OPERA: Alleviating Hallucination in Multi-Modal Large Language Models via Over-Trust Penalty and Retrospection-Allocation
Paper · 2023 · Qidong Huang, Xiaoyi Dong, Pan Zhang et al.
Summary
Multi-modal large language models (MLLMs) often describe objects, colours, counts or positions that do not appear in the input image. Earlier remedies rely on extra instruction data, retraining, or external models and knowledge. This paper introduces OPERA, a decoding-time method that needs none of these. Looking at self-attention maps, the authors notice column-shaped patterns on uninformative tokens such as full stops. Subsequent tokens rely heavily on these "summary" tokens rather than on the image tokens at the start of the sequence, and hallucinated content tends to follow shortly after. OPERA changes beam search in two ways. First, it penalises candidates according to a column-wise attention score computed in a local window, so continuations showing over-trust are less likely to be chosen. Second, when the peak penalty repeatedly falls on the same position beyond a threshold, it rolls decoding back to that summary token and selects another continuation. Tested on four MLLMs with several hallucination metrics and GPT-4/GPT-4V judging, OPERA reduces hallucinations. It is a nearly free, training-free add-on for more faithful image descriptions.
Key points
- Evaluated on InstructBLIP, MiniGPT-4, LLaVA-1.5 and Shikra. It works purely at inference, with no added data, knowledge or training.
- Pilot analysis on 5,000 random MSCOCO images showed that CHAIR scores (CHAIR_s, CHAIR_i) rise as more summary/anchor tokens appear in the generated text. Hallucinations typically begin within 10 tokens after such a pattern, which matches the "anchor token" finding from NLP.
- GPT-4V rated beam-search and OPERA descriptions on a 0–10 scale for Accuracy and Detailedness. The exact benchmark scores were not included in the supplied text.
- OPERA also curbs degenerate repetition, for example MiniGPT-4 looping over the same oven sentence under plain beam search.
- Limitations: OPERA gives only marginal gains on short answers (< 10 tokens) because the patterns appear with a delay. It struggles when the model's learned biases are strong (e.g., "road" → "cars") or when its visual perception is weak.
