Optimizing RAG Rerankers with LLM Feedback via Reinforcement Learning
Paper · 2026 · Yuhang Wu, Xiangqing Shen, Fanfan Wang et al.
Summary
Rerankers in RAG pipelines are usually trained on fixed human relevance labels and judged by IR metrics such as NDCG, independent of the LLM that consumes the documents. As a result, passages that look topically relevant may not actually help the reader produce correct answers. The authors propose ReRanking Preference Optimization (RRPO), a reinforcement learning method that trains the reranker using the frozen reader's answer quality as the reward, so no human relevance annotations are needed.
Reranking is modeled as a finite-horizon MDP. A pointwise reranker repeatedly picks documents from the remaining candidates, and after each pick the reader's output is scored against the gold answer. Training uses a PPO-inspired clipped objective together with a reference-anchored deterministic baseline, which stabilizes learning without a separate critic network.
On HotpotQA and AmbigNQ, RRPO beats supervised rerankers and the list-wise RankZephyr. The learned policy also transfers to other readers. This matters because it ties retrieval directly to what the LLM finds useful, and it can be trained cheaply.
Key points
- Formulation: documents are chosen sequentially without replacement from top-N candidates. Selection probabilities are renormalized softmax scores from a pointwise reranker (GTE reranker). The reward at each step is a dataset-specific metric comparing the reader's answer with the ground truth.
- Comparison with RankZephyr: RRPO outperforms RankZephyr, a 7B list-wise LLM reranker, in the top-3 context setting on both HotpotQA and AmbigNQ.
- Combination with Query2Doc: the gains add up. On HotpotQA, EM/F1 goes from 28.87/42.06 with the GTE reranker to 30.51/44.10 with GTE trained by RRPO. On AmbigNQ, it goes from 38.76/53.14 to 39.81/54.10.
- Transfer across readers: the trained reranker helps without any reader-specific tuning, covering Qwen2.5 (3B–14B), Llama-3.1, GLM-4, Gemini-2.5-Flash, Claude-3.5-Sonnet and GPT-4o.
- Cheap supervision: a reranker trained with the small Qwen2.5-3B as supervisor (RRPO-3B) still improves results, from 22.59/30.69 to 23.36/31.56 EM/F1. Code is available at github.com/NUSTM/RRPO.
