REARANK: Reasoning Re-ranking Agent via Reinforcement Learning

Paper · 2025 · Le Zhang, Bo Wang, Xipeng Qiu et al.

Summary

REARANK tackles passage reranking with LLMs. Prompting-only rerankers do not learn from ranking feedback, supervised fine-tuning requires costly labelled lists, and the strongest systems rely on large proprietary models such as GPT-4. The authors fine-tune Qwen2.5-7B with GRPO-based reinforcement learning so that it writes explicit reasoning about each passage before producing a listwise ordering, applied through a sliding window over BM25 candidates. The reward is based on ranking quality, with a normalized nDCG variant highlighted in the analysis. To work around scarce annotations, they enlarge a seed of only 179 labelled queries by repeatedly sampling different candidate passage sets per query while keeping the same relevance judgments. The resulting REARANK-7B clearly beats its base model and is roughly on par with GPT-4 and Qwen3-32B on TREC-DL and BEIR. According to the authors, it outperforms GPT-4 on the reasoning-heavy BRIGHT benchmark. This shows that a small, locally deployable reranker can produce interpretable rankings and reach strong performance with very little labelled data.

Key points

  • Training data comes from just 179 annotated queries, expanded by sampling many passage subsets per query. Optimization uses GRPO with a ranking-aware reward and no supervised cold start.
  • Average scores for REARANK-7B are 72.0 on TREC-DL, 54.6 on BEIR and 17.7 on BRIGHT. Base Qwen2.5-7B scores 65.5, 50.1 and 15.0, while Qwen3-32B with thinking scores 71.6, 54.1 and 18.2.
  • Turning off reasoning lowers REARANK-7B by 3.9 points on TREC-DL, 1.7 on BEIR and 1.3 on BRIGHT. For Qwen3-32B, its thinking mode shifts scores by less than one point.
  • Gains appear to carry over to math: pass@1 rises from 11.87 to 12.92 on AIME 2024 and from 51.41 to 52.66 on AMC, compared with Qwen2.5-7B-Instruct.
  • On BRIGHT biology samples, longer reasoning chains showed no clear link to better rankings. Code is published at github.com/lezhang7/Rearank.
