Anti-Length Shift: Dynamic Outlier Truncation for Training Efficient Reasoning Models
Paper · 2026 · Wei Wu, Liyi Chen, Congxi Xiao et al.
Summary
Reasoning models trained with RLVR tend to write very long chains of thought even for easy questions, which makes deployment expensive. Most efficiency methods add length penalties to the reward, but these can conflict with accuracy and do not explain where the verbosity comes from. The authors analyze GRPO and SFT training and describe "length shift": queries the model already answers correctly receive longer and longer responses over training. This growth comes with more frequent reflection markers such as "wait". They argue that exploration habits learned on hard problems spill over to trivial ones. Their remedy is Dynamic Outlier Truncation (DOT). In rollout groups where every answer is correct, DOT cuts responses whose length exceeds the group mean plus α standard deviations, then recomputes the reward. Two additions keep training stable: an auxiliary KL regularizer that prevents entropy collapse, and predictive dynamic sampling. Tests on 1.5B, 7B and 32B models show a clearly better trade-off between accuracy and token cost. The method is simple to plug into existing RL training.
Key points
- The truncation threshold is T = µ + α·σ, computed after sampling from length statistics of all-correct groups. Hard queries are never constrained, and only about 0.5% of responses are actually truncated.
- On AIME-24 with DeepSeek-R1-Distill-Qwen-1.5B, DOT uses 21.6% of the original average tokens and raises pass@1 from 30.0% to 43.1%. The headline claim is a 78% cut in inference tokens together with higher accuracy.
- Compared with SIRI, a state-of-the-art efficient reasoning method, DOT needs only about one third of the tokens on AIME-24 at roughly equal accuracy.
- Training builds on GRPO without a KL penalty to a reference policy, following DAPO. Predictive dynamic sampling adjusts the oversampling rate as the pass rate improves, which keeps the effective batch size on target.
- Stated limitations:
- Gains are hard to obtain for heavily post-trained frontier models such as DeepSeek-V3.2 and Qwen3-235B-A22B-Thinking, because their policy entropy is low.
- Agentic tasks are not yet studied.
- Code is available at github.com/U-rara/DOT, and models are at hf.co/collections/U-rara/dot.
