Who Wrote This? The Key to Zero-Shot LLM-Generated Text Detection Is GECScore
Paper · 2025 · Junchao Wu, Runzhe Zhan, Derek F. Wong et al.
Summary
Detectors for machine-generated text usually need large labeled training sets (supervised classifiers) or access to the generating model's logits (white-box zero-shot methods such as DetectGPT or Fast-DetectGPT). This paper proposes GECScore, a black-box zero-shot detector that needs neither. It rests on the idea that, from an LLM's point of view, human prose contains more grammatical errors than LLM output. Using the XSum and Writing Prompts datasets, the authors test this by having GPT-4o flag errors in human-written texts as well as in outputs produced by Llama-3-70B, Claude-3.5-Sonnet, PaLM-2-bison and GPT-3.5-turbo. The method passes a text through a grammar error correction model (GPT-4o-Mini or COEDIT-L). It then measures how similar the corrected version is to the original. If similarity exceeds a threshold, the text is labeled as LLM-generated. GECScore reaches an average AUROC of 98.62%, beating both zero-shot and supervised baselines. It also generalizes well across domains and generators and holds up better under paraphrasing. This matters because practical detection rarely has model access or abundant labeled data.
Key points
- Hypothesis check: GPT-4o annotations show human texts typically need about 10–30 correction edits, while LLM outputs need roughly 0–10, often near zero. The gap is smaller for formal XSum texts.
- Main result: an average AUROC of 98.62% on XSum and Writing Prompts, ahead of Log-Likelihood, Log-Rank, LRR, NPR, DetectGPT, Fast-DetectGPT, Revise-Detect and a RoBERTa-base classifier.
- Cross-domain (XSum ↔ WP): GECScore (GPT-4o-Mini) loses only 3.39% AUROC on average and stays above 94%. Fast-DetectGPT loses 8.12%. The COEDIT-L variant is weaker here, dropping 13.84%.
- Cross-generator (GPT-3.5 ↔ Claude-3.5): the GPT-4o-Mini variant drops about 3.6% and stays above 95% AUROC, while COEDIT-L drops 4.71%. Under a T5 paraphrase attack, zero-shot baselines lose 12.93% AUROC on average, and GECScore remains the most competitive.
- Limitations: the method needs complete texts and could be fooled by deliberately injected grammar errors. Code and data are available at github.com/NLP2CT/GECScore.
