LLM Agents Making Agent Tools

Paper · 2025 · Georg Wölflein, Dyke Ferber, Daniel Truhn et al.

Summary

LLM agents depend on tools that humans must build and integrate beforehand. This becomes a bottleneck in fields like medicine and the life sciences, which need many specialised tools. Earlier tool-creation systems wrote small functions from scratch and could not work with the operating system. The authors present ToolMaker, an agentic framework that turns the public code repository behind a scientific paper into a tool an LLM can call. It needs only a short task description, a GitHub URL and example input arguments. It works in two stages. First, it sets up the environment, saved as a Docker image, by installing dependencies and fetching models. Second, it writes a Python function for the task and debugs it in a closed self-correction loop. To test it, the authors built TM-Bench, a set of 15 open-ended tasks from medical and non-medical areas with more than 100 unit tests. Using gpt-4o, ToolMaker produces correct tools for 80% of tasks, far ahead of the OpenHands software-engineering agent. This points toward agents that can expand their own toolsets for scientific workflows.

Key points

  • TM-Bench covers 15 tasks in pathology, radiology, omics, LLMs and 3D vision. Agents must handle the full workflow themselves, from installing dependencies to implementing and testing code, rather than assuming a prepared environment.
  • ToolMaker vs. OpenHands (gpt-4o): ToolMaker solved 12/15 tools, 37/42 invocations and 116/124 tests. OpenHands solved 3/15 tools, 9/42 invocations and 31/124 tests.
  • Cost: ToolMaker averaged about $0.94 and 21.8 actions per tool. A paper summary reduced the self-correction iterations needed for some tools, such as stamp_train_classification_model, which dropped from 9 iterations to 5.
  • Model choice: Switching to o3-mini lowered cost but hurt accuracy for both systems. OpenHands with Claude 3.5 Sonnet scored below its gpt-4o version.
  • Availability and limits: Code and benchmark are released at github.com/KatherLab/ToolMaker. The authors note that the approach assumes well-maintained repositories, that unit tests cannot guarantee real-world correctness, and that the method carries dual-use risks in the life sciences.
