Reinforced Informativeness Optimization for Long-Form Retrieval-Augmented Generation
Paper · 2026 · Yuhao Wang, Ruiyang Ren, Yucheng Wang et al.
Summary
Reinforcement learning has improved LLMs on math and short-answer QA, where outputs can be checked against a single correct target. Long-form RAG answers have no such target, so current rewards, whether rule-based or LLM-judged, give noisy and unreliable signals. The authors propose RioRAG, which makes informativeness a verifiable RL objective. Here informativeness means the share of evidence-backed key points that an answer covers.
For each query, the retrieved web pages are broken into short factual "nuggets". These are clustered and deduplicated into a single checklist. The reward is the fraction of checklist items the answer covers, with a length-decay term that discourages padding. Training uses only ELI5 questions, with the human answers discarded, plus live web retrieval and GRPO. Markdown headers separate reasoning from the answer instead of new special tokens. No teacher distillation or handcrafted policy supervision is required.
In zero-shot evaluation on LongFact and RAGChecker, RioRAG improves factual recall and faithfulness over state-of-the-art baselines. This supports verifiable rewards as a basis for trustworthy long-form RAG.
Key points
- Reward pipeline: the reward model works in three stages: nugget extraction from each retrieved document, merging into an evidence checklist, and a coverage score traceable to source documents. Only the final answer is scored; the reasoning part is ignored (ORM setup).
- Training setup: training uses ELI5 queries with top-K webpages retrieved dynamically, and GRPO normalizes rewards within each sampled group to stabilize learning.
- Length decay: without it, the model inflates answer length while the reward barely changes, which is a form of reward hacking. With it, answers first grow and then shrink at stable reward, raising information density.
- Scaling: RioRAG beats SFT across all Qwen2.5 sizes tested (1.5B, 7B, 14B), though gains grow sublinearly with model size.
- Cold-start effect: initialization matters for RL. Qwen2.5-7B-Instruct gains 24.4% after RL, and R1-Distilled-Qwen2.5-7B gains 29.6%, while the base model struggles to explore. Code is available at github.com/RUCAIBox/RioRAG.
