Improving Named Entity Recognition by External Context Retrieving and Cooperative Learning

Paper · 2021 · Xinyu Wang, Yong Jiang, Nguyen Bach et al.

Summary

Many NER inputs, such as tweets, search queries and product comments, are short and have no surrounding document. Document-level context is known to help NER, so the authors manufacture context for isolated sentences. Each sentence is sent as a query to an off-the-shelf search engine (Google Search). The returned snippets are re-ranked by semantic closeness using BERTScore F1, and the top few are appended after a separator token. This "retrieval-based view" goes into a transformer embedding model with a CRF tagging layer.

Retrieval adds latency, which online serving may not tolerate. To also strengthen the plain sentence-only view, the authors introduce Cooperative Learning (CL). CL trains one shared model on both views and penalizes disagreement between them, with gradients blocked through the context-enriched branch.

Across 8 NER datasets in 5 domains, adding retrieved context clearly improves accuracy. CL further boosts both views, and the method reaches new state-of-the-art results. This matters for low-context, social-media-style text.

Key points

  • Re-ranking: retrieved texts are scored against the query with BERTScore (cosine similarity of token embeddings, combined as an F1 of precision and recall). The top l texts become the external context.
  • Two CL variants:
    • L2 distance between the token representations of the two views.
    • KL divergence between the CRF label distributions of the two views.
  • Joint training: the objective sums the NLL losses of both views plus the CL term.
  • Evaluation and resources: new state-of-the-art results on 8 datasets spanning 5 domains, with WNUT-17 used as the motivating example. Using unlabeled data in a semi-supervised setup gives further gains. Code is released as CLNER (github.com/Alibaba-NLP/CLNER).
  • Ablations and related work: ablations compare cross-view train/test, joint training without the CL loss, and combining both CL losses. The authors distinguish CL from Cross-View Training and from knowledge distillation: CL trains a single model that improves both views, with no auxiliary modules.
