Automated Concatenation of Embeddings for Structured Prediction

Paper · 2021 · Xinyu Wang, Yong Jiang, Nguyen Bach et al.

Summary

Concatenating several kinds of word embeddings (contextual ones like BERT, XLM-R, ELMo and Flair, plus static word and character vectors) often helps structured prediction. However, the best combination depends on the task, and trying every subset is too expensive. The authors propose ACE (Automated Concatenation of Embeddings), which treats this choice as a neural architecture search problem.

A lightweight controller holds a belief about how useful each candidate embedding is. It samples a subset, and a task model is trained on that concatenation: BiLSTM-CRF for sequence outputs, BiLSTM-Biaffine for graph outputs. The model's development accuracy becomes a reward, and the controller is updated with policy gradient. A custom reward credits each embedding by comparing the current selection with all earlier ones.

Across 6 tasks and 21 datasets (NER, POS tagging, chunking, aspect extraction, dependency and semantic dependency parsing), ACE beats strong baselines. Combined with fine-tuned embeddings, it reaches state-of-the-art results. The search needs only a few GPU-hours on a single GPU, which makes embedding selection practical rather than guesswork.

Key points

  • Search space. Each embedding candidate is an isolated node with no edges between nodes, so the search reduces to choosing a binary mask over L embeddings. ACE also avoids the final retraining step typical of NAS.
  • Cost. The search fits on one GPU in a few GPU-hours. By contrast, the related-work section notes that Zoph and Le (2017) needed 22,400 GPU-hours on CIFAR-10.
  • Dependency parsing. On PTB, ACE+Fine-tune reaches 97.2 UAS / 95.8 LAS. On DM in-domain SDP it scores 95.6, ahead of the listed prior systems.
  • Reward ablation. The full reward scores 93.18 dev / 90.00 test. Dropping the discount gives 89.90 test, and the simple reward gives 89.82 test.
  • Baseline comparison. ACE outperforms using all embeddings (All), random search, sigmoid-weighted embeddings (All+Weight) and voting ensembles. It even beats an oracle ensemble selected on the test set. In the CoNLL English NER plots, it also finds good selections faster than random search.

Interesting ideas

  • I1. Embedding choice as a binary mask. Framing feature-source selection as a mask searched with REINFORCE avoids any architecture graph. It could transfer to choosing which multilingual or language-specific encoders to stack, for example for UD treebanks in lower-resource languages.
  • I2. Reward from differences between selections. Each reward is accumulated over the changes between the current concatenation and all previous ones, with a discount. This assigns credit to individual embeddings rather than whole subsets, which helps whenever many expensive configurations are evaluated sequentially.
  • I3. Oracle upper bound for a baseline. The authors also pick the best ensemble directly on test data, giving the ensemble a ceiling no real system could reach. Beating that ceiling is a strong, honest way to argue that a method is better, not just better tuned.
  • I4. Cheap exhaustive ensemble search. Model outputs are cached, voting needs no training, and prediction confidence breaks ties. This makes it feasible to evaluate all 2^L−1 ensembles quickly, which is a useful sanity-check baseline for any multi-model setup.
  • I5. Pruning for deployment. The search can drop embeddings that add little, and the strong searched model can then teach a smaller one via knowledge distillation. Together these give a route to systems that are both accurate and cheaper to run.
