RARE: Retrieval-Augmented Reasoning Enhancement for Large Language Models
Paper · 2025 · Hieu Tran, Zonghai Yao, Zhichao Yang et al.
Summary
Answering knowledge-heavy questions, especially in medicine, requires both several reasoning steps and facts that a pretrained model may lack or hold only in outdated form. The authors present RARE, which extends the rStar framework. In rStar, an LLM explores reasoning actions via Monte Carlo Tree Search (MCTS) and a second model checks the resulting paths. RARE adds two retrieval-based actions to the search. A6 writes several search queries from the original question and answers using the fetched documents. A7 retrieves evidence for each generated sub-question and re-answers it. RARE also replaces rStar's discriminator with a Retrieval-Augmented Factuality Scorer (RAFS). RAFS breaks a candidate reasoning path into statements, checks them against retrieved evidence, and selects the best-supported path. The method needs no training or fine-tuning. It was evaluated on three medical and three general/commonsense QA tasks. With LLaMA 3.1, RARE brings open-source models close to closed systems such as GPT-4 and GPT-4o. This suggests a practical, model-agnostic way to make open LLMs more factually reliable.
Key points
- RARE builds on rStar's five actions (A1–A5) and adds A6 (multi-query retrieval from the main question) and A7 (retrieval plus re-answering for sub-questions).
- RAFS works in three steps: it splits a reasoning path into statements, generates queries for each, and scores the path by its agreement with the retrieved evidence. The top-scoring path gives the final answer.
- Unlike SeRTS, which issues one query at a time depth-first, RARE can explore breadth-first through A6. It can also skip retrieval entirely for simple questions.
- Experiments used LLaMA 3.1 across 3 medical and 3 commonsense QA benchmarks. Two USMLE-passed medical experts, paid $40/hour, carried out the human evaluation.
- The method was not run on proprietary models because of API costs. It is limited to MCTS without a trained reward model, and has been tested only on English text. Code is announced at github.com/fatebreaker/RARE.
