MIRAGE-Bench: Automatic Multilingual Benchmark Arena for Retrieval-Augmented Generation Systems

Paper · 2025 · Nandan Thakur, Suleman Kazi, Ge Luo et al.

Summary

Most RAG benchmarks cover only English. They also force a trade-off. Heuristic metrics are cheap but need human preference data as a reference and are hard to merge into one ranking. Arena-style pairwise comparisons judged by an LLM are reliable but expensive: one query across 19 models means 171 GPT-4o comparisons, costing roughly $5–10. MIRAGE-Bench addresses both problems. It is a multilingual benchmark for the answer-generation stage of RAG in 18 languages, built on Wikipedia queries and oracle relevance judgments reused from MIRACL. The authors score each model response with seven cheap heuristic features. They run exhaustive GPT-4o pairwise judgments on only 100 queries and fit a Bradley-Terry model to those results. A random forest, acting as a surrogate judge, then learns to predict the Bradley-Terry logits from the heuristic features, with bootstrapping used for confidence estimates. The surrogate's rankings closely match the GPT-4o arena (Kendall Tau 0.909). This makes it possible to rank new models cheaply without calling an LLM judge again.

Key points

  • Data: Drawn from MIRACL, the benchmark spans 18 languages and includes 11,195 pairs for evaluation plus 39,763 pairs for training. No training data exists for German (de) or Yoruba (yo).
  • Features: The seven heuristic features are language detection, citation quality, support, reranker score, traditional answer overlap, LLM-measured answer overlap, and LLM-measured fluency. Dropping the weakly correlated features (language detection and support) improved the surrogate.
  • Leaderboard: Of the 19 multilingual LLMs tested, proprietary models and large open models (about 70B parameters and up) take the top ranks. Smaller open models lag behind.
  • Fine-tuning: Mistral-v0.2 (7B) fine-tuned on GPT-4o-distilled MIRAGE-Bench training data reached rank 2, ahead of Llama-3 (70B).
  • Limitations: The benchmark uses oracle passages only, so retrieval errors are not measured. It relies on a single judge (GPT-4o), which may favour OpenAI models. It has no human-written reference answers and covers Wikipedia only. Code and data are available at github.com/vectara/mirage-bench.
