Human-Timescale Adaptation in an Open-Ended Task Space
Paper · 2023 · Adaptive Agent Team, Jakob Bauer, Kate Baumli et al.
Summary
Large pretrained models adapt quickly to new tasks in language and vision, but reinforcement learning has had no comparable general-purpose learner. DeepMind's Adaptive Agents Team asks whether RL at scale can produce an agent that solves unfamiliar 3D tasks within minutes, about as fast as people. They build XLand 2.0, a procedurally generated 3D world where partly hidden "production rules" govern how objects transform. This yields an enormous pool of sparse-reward, partially observable tasks. The agent, AdA, is trained with black-box meta-RL. Each episode repeats one task over several trials while memory carries over, so a Transformer-XL memory learns an implicit adaptation procedure. An automated curriculum supplies tasks near the limit of the agent's ability, and distillation makes large networks trainable. On held-out tasks, with no weight updates, AdA explores systematically, then exploits and refines its solutions. A human study finds its adaptation speed comparable to trained players. Gains scale with model size, memory length and task diversity, suggesting a route toward RL foundation models.
Key points
- XLand 2.0 adds production rules to XLand 1.0. Each rule pairs a condition with objects that spawn when it is met. Rules, objects or predicates can be masked, and the space contains over 10^40 possible tasks.
- Trials last 10–40 s. The agent sees every 4th frame of a 30 fps environment, giving 75–300 timesteps per trial. Episodes consist of k trials with persistent memory.
- The training recipe combines meta-RL, attention-based memory (Transformer-XL) and a fitness-filtered auto-curriculum. Distillation enables a model with over 500M parameters, which the authors describe as the largest trained from scratch with RL at publication time.
- Attention-based memory exploits the curriculum signal much better than purely recurrent networks.
- Zero-shot prompting with first-person demonstrations further improves few-shot performance. The authors present this as analogous to prompting large language models.
