Scaling Laws with Vocabulary: Larger Models Deserve Larger Vocabularies
Summary
Standard scaling laws for LLMs predict loss from parameter count and training data but treat vocabulary size as fixed. This gap leaves models of similar size with very different vocabularies, such as 32K in Llama2-7B versus 256K in Gemma-7B. Tao et al. ask how large the vocabulary should be for a given compute budget. They separate vocabulary parameters from non-vocabulary parameters and measure data in characters rather than tokens. To compare models fairly across vocabulary sizes, they use a unigram-normalized loss. They trained English models ranging in size between 33M and 3B parameters, using as many as 500B characters of training data, and estimated the optimum in three ways: IsoFLOPs power-law fits, a derivative-based solution, and a Chinchilla-style parametric loss extended with vocabulary terms. All three methods agree. The best vocabulary grows with compute, though more slowly than the rest of the model, and most public LLMs use vocabularies that are too small. Experiments with 3B models confirm downstream gains at equal FLOPs. The authors conclude that tokenizer design should be planned together with model scaling.
Key points
- Optimal vocabulary parameters follow a power law in non-vocabulary parameters with exponent γ ≈ 0.83, so they should grow sub-linearly.
- For Llama2-70B, the authors estimate the optimal vocabulary at no less than 216K, about 7× its actual 32K.
- At a fixed 2.3e21 FLOPs, enlarging the vocabulary from 32K to 43K lifted ARC-Challenge accuracy from 29.1 to 32.0.
- Tokens per character are approximated by a quadratic function of log V, fitted on BPE tokenizers spanning 1K–1024K. With N_nv = 302M, the best vocabulary drops from 16K to 10K when data is scarce and rises to 24K when data is abundant.
- The paper appeared at NeurIPS 2024. Code is at github.com/sail-sg/scaling-with-vocab, and a demo is on the Hugging Face Space sail/scaling-with-vocab-demo.
