ProxyQA: An Alternative Framework for Evaluating Long-Form Text Generation with Large Language Models
Paper · 2024 · Haochen Tan, Zhijiang Guo, Zhan Shi et al.
Summary
Evaluating how well LLMs write long texts such as reports or articles is difficult. Reference-based metrics like ROUGE need gold texts that rarely exist and often disagree with people. Crowdsourced judging is slow and inconsistent, and LLM-as-a-judge can be biased and lack recent knowledge. ProxyQA takes a different approach. Experts wrote 100 meta-questions across domains such as AI research, history, sports, games, music and economics, each split into easy or hard. Every meta-question has a hidden set of proxy-questions, mostly true/false, with annotated answers. The tested model writes a long answer to the meta-question. An evaluator (GPT-4) then reads only that text and tries to answer the proxy-questions, so its accuracy measures how informative and complete the text is. Because the proxy-questions are not public, data contamination is limited. Experiments with open and commercial LLMs, including retrieval-augmented systems, show that the benchmark is demanding. Human studies indicate that ProxyQA is more self-consistent than human annotators and agrees better with the human majority than GPT judges do.
Key points
- 100 meta-questions created by five researchers; difficulty is split by whether Wikipedia alone was enough to annotate (easy) or not (hard).
- Self-agreement: ProxyQA reaches 88.00%, versus 52.19% among human experts.
- Agreement with the human majority: 66.19% (M2G) and 63.33% (G2M), ahead of GPT-as-judge, which favours GPT-4-Turbo outputs.
- On 100 sampled proxy-questions, human checks found the GPT-4 evaluator correct 91% of the time.
- Limitations: the benchmark targets informativeness and coverage, not hallucination or coherence; the dataset and leaderboard are at proxy-qa.com.
