Entropy Ratio Clipping as a Soft Global Constraint for Stable Reinforcement Learning

Paper · 2026 · Zhenpeng Su, Leiyu Pan, Minxuan Lv et al.

Summary

LLM post-training with reinforcement learning is usually off-policy, so updates use samples from older policies. The resulting distribution shift can push the policy outside its trust region, which shows up as erratic policy entropy and unstable gradient norms. PPO-clip bounds the importance ratio only for tokens that were actually sampled, so the probability mass of unsampled tokens can drift freely.

The authors measure this global drift with the entropy ratio: the token-level entropy of the current policy divided by that of the old policy, computed on the same context. Their Entropy Ratio Clipping (ERC) drops the gradient of any token whose ratio falls outside a two-sided interval. ERC works alongside PPO-clip rather than replacing it. It was added to DAPO and GPPO and tested on mathematical reasoning with DS-R1-Distill-Qwen models.

ERC steadies entropy and gradients and keeps importance ratios closer to 1. It also raises benchmark accuracy over the base algorithms, KL penalties, entropy bonuses and sequence-level clipping. This makes it a lightweight drop-in stabilizer for RLVR training.

Key points

  • Motivating example: a sampled token's probability moves only from 0.85 to 0.82, so PPO-clip does not intervene. Yet the rest of the distribution shifts and entropy rises from 0.422 to 0.666. Global drift is strongest for tokens with very low (<0.2) or high (>0.6) sampling probability.
  • Variants and models: ERC-DAPO and ERC-GPPO were evaluated on AIME24 and AIME25, among other benchmarks, using DS-R1-Distill-Qwen-1.5B and DS-R1-Distill-Qwen-7B.
  • Comparison with regularization: ERC beat KL-regularized PPO-penalty, which constrains each action pointwise and limits exploration. It also beat entropy regularization (coefficients 0.001 and 0.003), which guards against entropy collapse but not entropy explosion.
  • Comparison with GSPO: on the 7B model, ERC-DAPO consistently surpassed GSPO's sequence-level clipping, which removed about 15% of tokens. The two techniques are orthogonal and could be combined.
  • Limitation: validation covers only math reasoning; code generation and agentic RL remain untested.
