Activation Steering Decoding: Mitigating Hallucination in Large Vision-Language Models through Bidirectional Hidden State Intervention
Paper · 2025 · Jingran Su, Jingfan Chen, Hongxin Li et al.
Summary
Large Vision-Language Models (LVLMs) often hallucinate, describing things that do not appear in the input image. The authors approach this through the model's internal representations. They prompted LLaVA-style models to describe MSCOCO images and labeled each token's hidden state by whether its sentence mentions an object missing from the image annotations. Linear probing on these states showed that hallucinated content occupies a separable region of activation space. From this, they compute a steering vector as the difference between the mean activations of hallucinated and non-hallucinated tokens. Their method, Activation Steering Decoding (ASD), runs two forward passes at inference time, one shifting activations toward the hallucination direction and one shifting them away. It then contrasts the two sets of logits to suppress hallucination-related predictions. ASD needs no retraining or architectural changes and only a small calibration set. It substantially reduces hallucination on CHAIR and POPE while preserving general visual understanding. This makes it a practical add-on for models that are already deployed.
Key points
- Calibration data come from MSCOCO's 80 object categories, expanded with synonym lists. Sentences are split with NLTK, and a token is labeled hallucinated if its sentence names an object absent from the ground truth.
- The final logits are computed as logit_π+ + α(logit_π+ − logit_π−). Hyperparameters are the steering intensity λ and the contrast coefficient α.
- The authors report gains of over 10% on CHAIR and over 10 F1 points on POPE. The best ablation setting (λ = 0.2 positive, λ = 0.4 negative) reaches 88.01% accuracy, 2.88 points above the baseline.
- Using only 100 calibration images already yields clear improvements. Steering alone, without contrast decoding, transfers poorly beyond COCO and degrades output at high λ (about 3–3.5% drops on AOKVQA/GQA at λ = 0.5).
- On an NVIDIA L20 with LLaVA-1.5-7B, batching both branches in parallel adds about 11.6–18.6% latency. The method only targets object-level hallucination.
