Language Models that Seek for Knowledge: Modular Search & Generation for Dialogue and Prompt Completion
Paper · 2022 · Kurt Shuster, Mojtaba Komeili, Leonard Adolphs et al.
Summary
Large language models often produce fluent but false statements, and their knowledge stops at the training date. This paper presents SeeKeR (Search-engine→Knowledge→Response), which extends the earlier K2R approach with internet search. One transformer runs three steps in sequence, each marked by special tokens:
- It writes a search query, sent to the Bing Web Search API.
- It copies the relevant passage from the returned documents.
- It composes the final reply from the context plus that extracted knowledge.
Each step's output is passed to the next. The modules are trained on many knowledge-heavy datasets: WizInt, Wizard of Wikipedia, several QA corpora, open-domain dialogue sets and a Common Crawl subset.
In open-domain dialogue, human raters judged SeeKeR more consistent, knowledgeable and engaging than BlenderBot 2 at an equal parameter count. As a plain language model, SeeKeR was tested on prompts about January 2022 news, which it had never seen in training. It gave more true and more topical continuations with fewer hallucinations than GPT2 and GPT3. Live search lets a small model draw on current facts, and the code and models are publicly released.
Key points
- Retrieval pipeline: search results come from the Bing API and are intersected with Common Crawl, keeping the top 5 documents. Encoder-decoder models read the documents via fusion-in-decoder (FiD); decoder-only models get them prepended to the context.
- Models:
- Language modeling: GPT2 medium, large and XL (345M, 762M, 1.5B) were fine-tuned without extra pre-training.
- Dialogue: a 2.7B encoder-decoder pre-trained on pushshift.io Reddit, optionally combined with RoBERTa+CC100en (the combination is called R2C2).
- Search training data: the search module learns from WizInt, which has 8,614 dialogues containing 42,306 human-written queries.
- Results against GPT2 and GPT3 on topical prompts:
- Versus GPT2, SeeKeR produced over 20% more true completions, about 20% fewer hallucinations and about 15% more topical outputs, though it was slightly less sensible.
- The 345M SeeKeR beat GPT2 XL.
- GPT3 hallucinated in 62% of cases and was topical in only 4%. SeeKeR beat it on both measures despite being about 500× smaller.
- Query tweak: adding "January 2022" to search queries raised topicality from 15% to 19% and reduced hallucinations.
