Neuronal Insights into LLM Attacks: Targeted Neuron Tuning for Precise and Robust Vulnerability Patching

Paper · 2026 · Dan Shi, Renren Jin, Zhuowen Han et al.

Summary

Safety-aligned LLMs can still be jailbroken, and it is not well understood which internal components such attacks exploit. Standard gradient-based neuron attribution needs a fixed correct answer, so it does not fit open-ended generation, where jailbreaks happen. The authors address this with a similarity-based gradient attribution. A neuron is treated as a column of the second FFN layer. Its importance is scored by how much the model's generated output changes as that neuron's activation is scaled from zero up to its original value.

Using the neurons each attack relies on, they find two patterns:

  • Universal neurons are shared across attacks, and attacks that resemble each other overlap more.
  • Interference neurons reduce safety gains when they are tuned indiscriminately.

From this they derive Targeted Neuron Tuning (TNT), which fine-tunes only attack-specific neurons on a small set of adversarial queries paired with safe refusals. Across several model families and sizes, TNT reaches safe rates above 90%, sometimes close to 100%, with little loss of general ability. This makes it a cheap, interpretable way to patch newly discovered jailbreaks.

Key points

  • Models and attacks: TNT was tested on Qwen2.5-0.5B-Instruct, Gemma-2B-it, LLaMA2-7B-Chat and LLaMA-3-8B-Instruct, against the DeepInception, DAP, MultiJail and Jailbroken attacks.
  • Shared vs. exclusive neurons: Fine-tuning neurons shared by several attacks improves robustness noticeably. Fine-tuning the union of neurons exclusive to single attacks helps little.
  • General ability retained: This was measured with the EleutherAI LM Evaluation Harness on ARC, HellaSwag, MMLU, TruthfulQA and Winogrande.
    • LLaMA-3-8B-Instruct's average went from 65.29 to 62.62–64.06.
    • LLaMA2-7B-Chat's average went from 58.97 to 57.10–59.48.
  • Generalization: TNT held up in four settings: cross-attack, leave-one-attack-out, unseen malicious instructions, and unseen instructions combined with unseen attacks.
  • Limitation: The method needs white-box access to activations and gradients, so it cannot be applied to API-only or closed models.
