JudgeAgent: Beyond Static Benchmarks for Knowledge-Driven and Dynamic LLM Evaluation
Paper · 2026 · Zhichao Shi, Xuhui Jiang, Chengjin Xu et al.
Summary
Static benchmarks for LLMs saturate quickly, cover a fixed slice of knowledge, risk contamination, and pose questions whose difficulty may not suit the model under test. JudgeAgent addresses this with an agent-based evaluator that works like a job interview in three stages. First, the target model takes a "written test" on a public benchmark, and a linear scoring rule produces an initial capability estimate. Second, the agent asks follow-up questions over several turns. It builds each question from knowledge sampled along paths in a context graph, where entities extracted from textbook or evidence chunks are linked to each other. The agent raises or lowers question difficulty according to the model's answers. Third, it reports the model's weaknesses and suggests how to address them. The authors test the framework on MedQA, MultiHop-RAG and QuALITY. They measure usefulness by feeding JudgeAgent's feedback back to the target via prompts and checking how much its accuracy improves. Ablations show that every component contributes, and the interactive extension stage matters most. The approach is most valuable when benchmarks may have leaked into training data or when model improvement needs to be targeted.
Key points
- Motivation: it took roughly three years for MMLU's best accuracy to climb to 80%, whereas GPQA hit that mark in just one year.
- Difficulty control: correct answers earn 1, 1.5 or 2 points for Easy, Medium and Hard questions. The next question's difficulty rises when the running average passes 0.5 (to Medium) or 1 (to Hard).
- Knowledge retrieval follows the SoG approach. Multi-hop sampling over a context graph supplies the background text, and GPT-4.1 performs entity extraction.
- Each additional interview round brings a smaller gain. For GPT-4.1 on MultiHop-RAG, per-round improvement falls from 2.04% to 1.13%, 0.71% and then 0.23%. Experiments therefore cap extension at 3 rounds.
- A case study with GLM4-Flash on MedQA shows JudgeAgent pinpointing gaps about duodenal and closed abdominal injury, after which the model fixes its answer. The code is released at github.com/DataArcTech/JudgeAgent.
