K-Merge: Online Continual Merging of Adapters for On-device Large Language Models
Paper · 2026 · Donald Shenaj, Ondrej Bohdal, Taha Ceritli et al.
Summary
On-device LLMs often depend on task-specific LoRA adapters, but phones have limited storage. New adapters also tend to arrive one at a time as users ask for new features. The authors formalize this as online continual merging. A device may keep at most K adapters. Each incoming single-task LoRA must be either placed in a free slot or fused with a stored adapter. This has to happen without training data, without the original single-task LoRAs, and with little compute. They propose two methods:
- K-Merge picks the stored adapter most similar to the newcomer by cosine similarity. It then merges the two linearly, with weights that account for how many tasks each side already represents (history-aware weighting).
- K-Merge++ adds a similarity threshold that decides whether to open a new slot or to merge.
Experiments use 40 tasks (5 problem types × 8 languages) on Llama-3.2-1B and Qwen-2.5-1.5B. Both methods beat Linear, TIES and DARE-style baselines. K-Merge++ is notably more robust when tasks arrive in adversarial orders. The approach makes it practical to grow on-device LLM capabilities incrementally under real storage limits.
Key points
- Setting: at most K stored LoRAs. Inference routing assumes a perfect task classifier, so that only the merging step is evaluated.
- Cost and storage: merging a new LoRA takes about 0.04–0.18 s with 2–8 stored adapters, and memory overhead is negligible. One LoRA is about 27MB (23M parameters, Llama-3.2-1B) or 34MB (37M parameters, Qwen-2.5-1.5B). Keeping all 40 would need roughly 1GB.
- Similarity metric: cosine similarity reached S(γ) scores of 0.75 (K=3) and 0.78 (K=5), clearly above L1, L2 and L∞ distances.
- Merging ablation: adding history-aware merging to TIES, DARE and DARE-TIES still scored lower than linear merging with history awareness, which is K-Merge itself.
- Adapter similarity: LoRAs for the same problem type resemble each other more than LoRAs for the same language. Under worst-case task orderings, Linear and TIES degrade strongly, while K-Merge++ stays stable.
