Data Distillation: A Survey
Paper · 2023 · Noveen Sachdeva and Julian McAuley
Summary
Training large neural networks on ever-growing datasets is slow, costly and energy-hungry. This survey by Sachdeva and McAuley reviews data distillation: building a very small set of synthetic examples that can replace the full dataset for model training, architecture search and other procedures that repeatedly pass over the data. The authors formalize the task through an ϵ-approximate data summary. They show that almost every existing method is a tractable surrogate of a bilevel optimization: an inner loop fits a model on the synthetic set, and an outer loop updates that set.
They sort the literature into four families: meta-model, gradient, trajectory and distribution matching. They compare image methods empirically, then cover graphs, recommender systems, continual learning and federated learning. Unlike coreset pruning, distilled points need not come from the original data, so they can be more expressive.
The paper serves as a structured map of the field. It closes with open problems: new modalities and tasks such as language modeling, scaling beyond tiny budgets, bilevel optimization theory, and dataset-level fairness and robustness.
Key points
- Four-family taxonomy:
- meta-model matching: DD, KIP, RFAD, FRePo, LinBa, Distill-CF
- gradient matching: DC, DSA, DCC, IDC, GCond, DosCond
- trajectory matching: MTT, HaBa, TESLA
- distribution matching: DM, CAFE, IT-GAN, KFS, GCDM
- Evaluation and speedup: methods are judged on performance, efficiency and transferability. Training on n synthetic points instead of |D| real ones gives roughly a |D|/n speedup. By "No Free Lunch", results depend on the learner and loss chosen during distillation.
- Limited scale: current methods are proven mostly with 1–50 samples per class. Larger summaries tend to fall back to random-sampling quality (Cui et al., 2022a). The underlying bilevel problem is NP-hard even with a linear inner problem.
- Federated and continual learning: sending distilled summaries to a server instead of model parameters reportedly beats parameter-sync federated methods. It also needs orders of magnitude less communication. A simple compress-then-recall scheme is strong in continual learning (Deng & Russakovsky, 2022).
- Comparison with pruning: coreset/pruning heuristics are limited to existing samples. Their gains transfer inconsistently, and random downsampling remains a hard baseline (Guo et al., 2022).
