Multi-task Active Learning for Pre-trained Transformer-based Models
Paper · 2022 · Guy Rotman and Roi Reichart
Summary
Multi-task learning lets a single model draw on several annotation layers over the same text. Labeling one corpus under multiple schemes, however, is slow and expensive. Active learning (AL) lowers labeling cost by repeatedly picking the unlabeled examples most useful to the model. Its multi-task form (MT-AL) had not yet been examined for modern pre-trained Transformers. Rotman and Reichart (TACL 2022) address this with a systematic study of confidence-based MT-AL: in each round, the sentences the model is least sure about are annotated for every task.
They compare single-task criteria (random, entropy, dropout agreement) with joint criteria that merge per-task confidences through averaging, maximum, minimum, Pareto ranking, Reciprocal Rank Fusion or independent selection. These are tested in three task relationships:
- complementary: dependency parsing + NER
- hierarchical: NER + relation extraction
- mixed granularity: slot filling + intent detection
Some variants add task weights or a binary linear programming (BLP) selection step. Multi-task selection usually outperforms single-task selection, and the Pareto-based criterion is the strongest on average. The work gives practical guidance for budgeting annotation of multi-layer corpora.
Key points
- Three scenarios are covered: DP + NER (complementary), NER + RE (hierarchical) and SF + ID (token-level vs. sentence-level). Joint criteria include MT-AVG, MT-MAX, MT-MIN, MT-PAR, MT-RRF and MT-IND.
- Uncertainty is measured with length- and label-normalized sentence entropy, or with agreement among k = 10 dropout-based model copies.
- In the greedy, uniform-weight comparison, MT-PAR has the best overall average (about 78.4), ahead of MT-RRF (about 78.4) and MT-MAX (about 78.3). Random multi-task selection (MT-R) is lowest at about 76.8.
- In the SF + ID setup, single-task AL trails the best method (MT-MIN with BLP) by 8.8 F1 on SF and 4.7 F1 on ID. Joint annotation beats disjoint or split-budget annotation, with 9 of 16 comparisons statistically significant.
- Choosing examples based on the higher-level task (RE, ID) often helps both tasks. The code is released at github.com/rotmanguy/MTAL.
