Dynamic Sampling that Adapts: Self-Aware Iterative Data Persistent Optimization for Mathematical Reasoning
Paper · 2026 · Jun Rao, Xuebo Liu, Hexuan Deng et al.
Summary
Data selection for training math-reasoning LLMs usually depends on fixed difficulty labels or external scorers. These labels ignore how the model's abilities shift during training: problems that start out hard become easy, and some "hard" items may simply lie outside what the model can learn from. The authors propose SAI-DPO, an iterative framework built on DPO that resamples training data in each cycle to match the current model's competence. It uses two signals. The first, Knowledge Semantic Alignment, has an expert model tag each problem's knowledge points, embeds the tags and clusters them, then up-weights clusters where the model makes many errors. The second, Self-Aware Difficulty, ranks problems mainly by how many of K sampled answers are correct, then by reasoning step count, then by output length. Across eight math benchmarks and four base models, the method beats static and curriculum baselines by up to roughly 6 points while using less data. The work suggests that difficulty should be measured relative to the learner, not fixed in advance.
Key points
- Evaluation covers 8 public math test sets, among them GSM, MATH, Minerva, Gaokao, Olympiad, College, AIME24 and AMC23. Four models were tested: Qwen2.5-7B-Math-Base, Qwen2.5-Math-7B-SFT, Llama3.1-8B-Instruct and Qwen3-8B.
- Knowledge tags are embedded with all-MiniLM-L6-v2 and grouped with K-Means. The best setting was 150 clusters (avg. 53.7); 50 clusters gave 52.1, and results also dropped at 200 and 250 clusters.
- Problems count as "solvable" when 0 < NoP < K. In each iteration, a cluster-proportional subset serves as a probe, and the hardest 50% of solvable items determine how the clusters are re-weighted.
- Ordering data by external difficulty from a DeepSeek-R1-Distill-Qwen-14B scorer lowered the average score below the baseline (49.9 vs. 52.0). The model's own difficulty metrics raised it to 53.7.
- A larger tag annotator helps: moving from 7B to 32B raised the average from 52.4 to 54.4, and AIME24 from 21.2 to 30.0. Limitations: only offline iterative DPO was studied (no PPO-style online RL), and only the math domain was tested.
