Improved Policy Optimization for Mixture-of-Experts Models: Importance Sampling and Rewarding from an Expert-Centric Perspective
Paper · 2026 · Yining Qian, Jinpeng Li, Fei Mi et al.
Summary
Fine-tuning Mixture-of-Experts (MoE) LLMs with reinforcement learning is often unstable. The router can send the same token to different experts under the old and updated policies, so token-level importance sampling (IS) ratios, as used in GRPO, become noisy. GSPO computes the ratio per sequence, which is more stable but gives every token the same weight. Routing replay and its softer variants restrict expert choice, add memory and communication cost, and may block better routing.
The authors propose Expert Relative Policy Optimization (ERPO), which has two parts:
- ExpertIS groups a response's tokens by their assigned expert and computes one length-normalized likelihood ratio per group. This sits between token-level and sequence-level granularity.
- Expert-Selection Entropy Reward uses the entropy of the router's distribution. It lowers routing uncertainty for highly rewarded responses and raises it for poorly rewarded ones.
On mathematical reasoning benchmarks with MoE models, ERPO beats GRPO and GSPO in accuracy and trains more stably. The results suggest that RL objectives work better when they follow MoE structure.
Key points
- Baselines and related methods: GRPO, GSPO, Routing Replay, RSPO, and Ice-Pop. The cluster-level ratio is the exponentiated difference of per-expert mean token log-likelihoods, with expert indices detached from the gradient.
- IS ratio stability: GRPO's IS ratios swing widely during training (roughly −2 to 4 on the paper's plot), while ERPO's stay stable.
- Routing consistency: Most experts keep a large share of the same tokens between old and new policies. Clusters under 100 tokens (of about 70k input tokens) were excluded from this analysis. This consistency justifies both the cluster-based ratios and the entropy-difference signal.
- Entropy ablations: GSPO and ERPO without the entropy reward keep output entropy high. GRPO and an absolute-entropy reward variant collapse entropy. Full ERPO lowers entropy in a controlled way and then holds it steady.
- Limitations and missing details: ERPO costs more compute than GRPO but avoids caching routing patterns. The provided excerpt does not include specific model names or benchmark scores.
