Towards Stable and Effective Reinforcement Learning for Mixture-of-Experts
Paper · 2026 · Di Zhang, Xun Wu, Shaohan Huang et al.
Summary
The paper addresses why reinforcement learning with verifiable rewards (RLVR) often breaks down when the policy is a Mixture-of-Experts (MoE) model, frequently ending in sudden reward collapse. The authors trace this to router shift: between policy updates, the experts chosen for a token, and their routing probabilities, can change. This widens the off-policy gap. Training logs show routing stability degrading over time, alongside spiking importance ratios and bursts of clipping that come before collapse.
Their fix is Router-Shift Policy Optimization (RSPO), a drop-in change to GRPO-style objectives. For each token, it measures how much the current router's probability on the previously activated top-K experts has dropped, averaged across MoE layers. This becomes a weight in (0, 1], which is detached from the gradient, given a minimum floor, and multiplied into the importance ratio before clipping and aggregation. Tokens with strongly shifted routing therefore count less, and the router is never frozen or forced to replay old decisions.
Experiments on Countdown (Qwen2.5-MoE) and math/code reasoning (Qwen3-30B-A3B) show more stable training and better results than GRPO, GSPO and GMPO. This matters for anyone post-training sparse models with RL.
Key points
- Router-shift ratio: γ = exp(−Δ), where Δ is the average log-probability drop on the old top-K experts across layers. The floor γ_min is set to 0.8, and the share of tokens falling below the floor is tracked as a diagnostic.
- Plug-in stabilizer: On Qwen2.5-MoE with the Countdown task, adding router-shift weighting stabilizes GRPO, GSPO and GMPO alike. The main large-scale variant is RSPO = GMPO + RS on Qwen3-30B-A3B, which improves Pass@1 on both math and code benchmarks.
- Rigid alternatives fall short: Freezing the router or replaying routing decisions performed worse in the authors' tests. Freezing limits how the router adapts to the RL objective, and replay restricts router exploration.
- Overhead: Caching the old routing statistics costs about 20.8% of training throughput compared with GMPO on Qwen3-30B-A3B.
- Limitations: Large-scale evaluation covers mainly one MoE architecture and only rule-based rewards. Interaction with MoE load-balancing losses is not studied.
