From Tokens to Steps: Verification-Aware Speculative Decoding for Efficient Multi-Step Reasoning
Paper · 2026 · Kiran Purohit, Ramasuri Narayanam and Soumyabrata Pal
Summary
In standard speculative decoding (SD), a compact draft model suggests tokens, and a bigger target model then verifies them. Because this check works token by token, a flawed reasoning step can slip through and spoil later steps. Reward-guided variants such as RSD add external process reward models, but these cost extra time and compute and often transfer poorly across tasks. The authors propose SpecGuard, which moves verification to the level of whole reasoning steps and uses only signals already inside the model. At each step:
- The draft model generates several candidates.
- A self-consistency selector picks the most representative one.
- An ensemble verifier scores it with two signals. The first is an attention-rollout grounding score that measures how much the step relies on the prompt and earlier accepted steps. The second is a token log-probability confidence score.
- Steps that score well are kept. Otherwise the target model regenerates the step, so expensive compute goes only where it is needed.
On math reasoning benchmarks, SpecGuard is both more accurate and faster than plain SD and reward-guided SD. This makes reliable step-level checking cheaper without any external verifier.
Key points
- Evaluated on MATH500, GSM8K, GaoKao and Olympiad. SpecGuard gains up to 3.6% accuracy and cuts latency by roughly 11% compared with SD and RSD.
- On GSM8K, SpecGuard reaches 95.8% accuracy in about 34 minutes. RSD Majority reaches 88.7% and needs over 41 minutes.
- Both verification signals take the minimum over the tokens in a step. A single weakly grounded or low-confidence token therefore cannot be hidden by averaging.
- Memory savings come from keeping attention only from the last 3 layers and dropping attention entries below 0.01. Ablations show this sparsification improves both accuracy and runtime.
- Accuracy keeps rising as more draft samples are drawn per step, until it levels off. RSD Majority instead degrades with larger sample sizes, which the authors attribute to accumulated noise from the reward model.
