What to Pre-Train on? Efficient Intermediate Task Selection

Paper · 2021 · Clifton Poth, Jonas Pfeiffer, Andreas Rücklé et al.

Summary

Training on an intermediate task before the target task can boost performance, but some source tasks help and others hurt. With so many datasets and pre-trained models available, trying every pairing is impractical. Poth et al. examine how to choose a good intermediate task cheaply. They focus on adapters, which are small trainable modules added to a frozen transformer.

First, they ran a large transfer study with BERT-base and RoBERTa-base. It covered 42 intermediate and 11 target English tasks, spanning classification, multiple choice, extractive QA and sequence tagging. Target training data was capped at 1000 examples to mimic low-resource settings. Gains turned out to be highly uneven across task pairs.

Second, they compared selection techniques under different assumptions about which data and models are accessible, and estimated the compute each technique needs. The techniques included sentence-embedding similarity (SEmb), TaskEmb, few-shot fine-tuning (FSFT) and simple baselines. Cheap embedding methods matched or beat costly fine-tuning ones, and the best ones reached roughly 1% Regret@3. In practice, this means a strong intermediate task can be picked without exhaustive training, saving compute.

Key points

  • With RoBERTa, about 53% of intermediate–target pairs improved results and 44% made them worse, with drops of up to 60%. The mean gain was 2.3%, and only 5 of the 11 targets benefited on average.
  • BERT and RoBERTa largely agree on which intermediate tasks work best, with a Spearman correlation of 0.94 over all settings and 0.68 per target. However, TaskEmb's effectiveness depends strongly on the base model.
  • Embedding-based selection needs about two orders of magnitude less computation than fine-tuning-based selection. SEmb gives the best cost/quality trade-off and performs similarly across Distill, Base and Large sentence encoders.
  • Transfer works better when the intermediate task shares its task type with the target. Ranking same-type tasks first raised NDCG in 77 of 99 method–target cases.
  • The code is released at github.com/Adapter-Hub/efficient-task-transfer.
