MLLM-Protector: Ensuring MLLM's Safety without Hurting Performance
Paper · 2024 · Renjie Pi, Tianyang Han, Jianshu Zhang et al.
Summary
Multimodal large language models such as LLaVA can be steered into harmful output by malicious images, even when the same request in plain text would be refused. The authors argue that images behave like an unaligned "foreign language." Aligning a model directly over the continuous image space is hard, and safety fine-tuning on scarce image-text data risks catastrophic forgetting. Their perplexity analysis supports this: with text-only input, harmful answers are less likely than harmless ones, but with images this pattern reverses.
Instead of retraining the MLLM, they propose MLLM-Protector, a plug-and-play add-on that splits safety into two easier subtasks:
- a lightweight harm detector scores each response;
- a separately trained detoxifier rewrites only the responses that are flagged.
Both components are trained on Safe-Harm-10K, a new ChatGPT-synthesized dataset that pairs a safe and a harmful answer for each question across many topics. The method sharply lowers harmful outputs while leaving the base model's abilities untouched. This makes it a practical route to safer MLLM deployment.
Key points
- Perplexity analysis (Table 2): with text-only input, harmful responses average 1.93 versus 1.24 for harmless ones. With SD+OCR image input, the order flips, at 1.60 versus 1.99.
- Six malicious scenarios are evaluated: Privacy Violation, Fraud, Hate Speech, Pornography, Malware Generation and Illegal Activity.
- Harm detector backbones tested were GPT-2, Pythia, OpenLLaMA-3B and LLaMA-7B. LLaMA-7B reached 85.05% average accuracy on SafeRLHF and 93.44% on Image QA, only slightly above OpenLLaMA-3B (84.93% and 92.40%). For this reason a small detector is used to keep latency low.
- In the detoxifier ablation, a separately tuned 7B detoxifier works best. For example, the Illegal Activity score drops from 77.3 for plain LLaVA to 0.0. A 3B detoxifier or reusing the MLLM's own LLM gives weaker results.
- Limitation: rewriting flagged responses adds computational overhead, so the authors suggest lighter detoxifiers as future work.
