LLäMmlein: Transparent, Compact and Competitive German-Only Language Models from Scratch
Paper · 2025 · Jan Pfister, Julia Wunderle and Andreas Hotho
Summary
German has few large language models that are built only on German data and documented openly. Most German-capable systems are multilingual or adapted from English, and they say little about their training corpora. The authors close this gap with LLäMmlein, a family of German-only decoder models with 120M and 1B parameters, trained from scratch on the Llama-style TinyLlama codebase. They took the head and middle quality tiers of the German part of RedPajama V2 and cleaned them with paragraph-level deduplication and a token-to-word ratio filter. They also fitted a dedicated 32k German tokenizer. Checkpoints were saved at regular intervals and scored on the SuperGLEBer benchmark to follow how learning unfolds. Both models matched or beat models of similar size, and the 1B model held up well against multilingual Llama 3.2 1B. Some tasks stopped improving early in training, which suggests compute could be allocated more carefully. The authors release the models, code, data and checkpoint-level data order, which makes the work a reproducible base for studying how data choices affect German LLMs.
Key points
- Data source. The data comes from RedPajama V2, keeping the head and middle tiers and dropping tail.
- Counted with the gbert-large tokenizer, this gives about 2.7 trillion German tokens before deduplication; the official extrapolated estimate was roughly 3T.
- About 1.9 billion documents are unique and 777 million are duplicates.
- Wikipedia is the largest source domain, with over 11.5M samples, followed by news sites such as welt.de.
- Cleaning.
- Boilerplate such as GDPR notices was removed with Dolma's Bloom-filter paragraph deduplication; paragraphs under three words were exempt.
- Paragraphs with more than 8 German GPT-2 tokens per whitespace word were dropped.
- Why the ratio filter was needed. Guitar-chord sequences slipped past the perplexity-based quality filter because they scored a perplexity of 41.2, against a snapshot average of 206.35.
- Training setup.
- The TinyLlama/lit-gpt codebase was used, with faster data loading and direct training from jsonl directories.
- The models were retrained so that the exact data points and their order are logged for every released checkpoint.
- The maximum context is 2048 tokens.
- Evaluation.
- Models were evaluated on SuperGLEBer and lm-evaluation-harness-de.
- Checkpoint averaging did not change results at all, probably because the checkpoints were 6–8 hours apart.
- Coding ability is weak, and dialects and literature were not tested.
Interesting ideas
- I1. A cheap signal for junk text is how many subword pieces a tokenizer needs per whitespace word, since URLs, paths and non-linguistic strings fragment heavily.
- I2. Low perplexity does not mean good text, because highly regular non-text patterns look "easy" to a language model and pass quality filters.
- I3. Logging exactly which examples entered training, and in what order, lets every checkpoint be traced back to its data.
- I4. Scoring regular checkpoints on a multi-task benchmark showed that some tasks plateau early, which can inform stopping points and compute budgets.
- I5. Paragraph-level deduplication removes repeated boilerplate, but exempting very short paragraphs avoids deleting legitimate frequent phrases such as list items.
For Mova
How these ideas could serve Mova, our small open language model — its files, stages and tests:
- I1 (tokens): compute this ratio in crate en before tagging, and route high-ratio spans (URLs, code, chord lines) to a non-linguistic token class instead of forcing them into morphology and lemmas.
- I2 (learn): when several witness parsers agree confidently on silver data, treat repetitive or patterned inputs as suspect, and add such strings as negative controls in evaluation.
- I3 (learn): record the ordered list of silver and teacher-labelled sentences behind each parser or repair-rule build, so a regression can be traced to the batch that introduced it.
- I4 (learn): track per-task learning curves for gparse and the readers across training snapshots, and stop or reallocate training once a task's curve flattens.
- I5 (tree): deduplicate silver treebank material at sentence or paragraph level to strip boilerplate, while keeping short frequent constructions that the parser still needs to see.
