SimpleOCR: Rendering Visual Questions to Teach MLLMs to Read

Paper · 2026 · Yibo Peng, Peng Xia, Ding Zhong et al.

Summary

The paper asks whether multimodal LLMs actually use their OCR skills during reasoning or mostly rely on the question supplied as text. To test this, the authors propose a Visualized-Question (VQ) setting. The question is drawn onto the image, and the model gets only a generic instruction to answer what it sees. Qwen2.5-VL-7B performs noticeably worse in this setting even though its standalone OCR is strong. The authors call this a capability–utilization gap and link it to "modality laziness."

Their fix, SimpleOCR, changes only the input. Training samples (from Geo3K and MMK12) are converted to the VQ format with randomized rendering styles, which removes the text shortcut. The model is then trained, mainly with GRPO. SimpleOCR needs no architectural changes, auxiliary losses or extra inference cost. Models trained this way do better on standard text-plus-image inputs, both in-domain and out-of-distribution, using far less data than competing RL recipes. Because it is plug-and-play, it can be layered onto other RL methods.

Key points

  • Diagnostic gap: In the VQ setting, Qwen2.5-VL-7B loses 6.9% on average across four reasoning benchmarks, with the largest drop (12.7%) on WeMath.
  • Main results:
    • In-domain, SimpleOCR beats the base model by 6.6% and image-based GRPO by 8.5%.
    • On OOD benchmarks (MathVerse, MathVision, MathVista, WeMath, HallusionBench), the margins are 5.4% and 2.7%, respectively.
  • Data efficiency: SimpleOCR uses about 8.5K training samples. It outperforms RL methods such as R1-VL and R1-Onevision that train on over 260K, roughly a 30x reduction.
  • Compatibility: Adding SimpleOCR to NoisyRollout gives complementary gains. In ablations, a GRPO group size of 6 worked best, with smaller and larger groups both doing worse.
  • Limitations:
    • The method only elicits OCR ability the base model already has.
    • Very long prompts are constrained by the vision encoder's resolution.
    • Code is available at github.com/aiming-lab/SimpleOCR.
