Making Reasoning Matter: Measuring and Improving Faithfulness of Chain-of-Thought Reasoning
Paper · 2024 · Debjit Paul, Robert West, Antoine Bosselut et al.
Summary
Chain-of-thought prompting often raises LLM accuracy, but it is unclear whether the final answer actually depends on the reasoning the model writes out. The authors use causal mediation analysis (Pearl, 2001) to measure this. The input problem is the treatment, the reasoning chain is the mediator, and the answer is the outcome. GPT-4 produced intervened problems and counterfactual chains, which were then manually filtered. The authors applied this framework to twelve LLMs on mathematical, commonsense, and causal-understanding tasks. Most models turned out to use their own reasoning steps only unreliably.
To address this, they propose FRODO, which trains two small LMs (under 10B parameters):
- Inference module: learns to produce correct rationales through DPO on LLM-generated pairs of correct and counterfactual chains, with no human labels.
- Reasoning module: is trained with counterfactual and causal preference objectives so that its answers follow those rationales.
FRODO beats supervised fine-tuning and CoT distillation baselines and is more robust and faithful. This makes it a practical recipe for small models whose explanations actually drive their predictions.
Key points
- Instruction-tuned models (GPT-3.5-Instruct, Mistral-Instruct-7B) show a stronger indirect effect of CoT on answers than RLHF-trained ones (ChatGPT, Llama-2-7B-Chat). Some tasks show inverse scaling, where more capable models rely less on their reasoning.
- When GPT-4 was given perturbed counterfactual chains, it changed its answer in only about 30% of cases.
- FRODO was evaluated on Quarel, StrategyQA, OpenBookQA and QASC with several backbones. It achieved 2–3% higher absolute accuracy than SFT or CoT distillation.
- FRODO improved robustness to counterfactual chains by +4.5% and out-of-distribution performance by +2.6% over SFT.
- Limitations: the method needs costly LLM-generated counterfactual data and longer DPO training. Code and data are public (debjitpaul.github.io/reasoningmatter).
