Multi-modal, Multi-task, Multi-criteria Automatic Evaluation with Vision Language Models
Summary
Most automatic metrics for text produced by vision-language models (VLMs) give a single overall score and are tuned to one task, usually image captioning. Because of this, they silently favour certain qualities, such as thorough coverage. When they are moved to other tasks, they can reward wordy or awkward outputs. The authors address this with HarmonicEval, a reference-free metric that builds the overall judgment from separate per-criterion ratings.
HarmonicEval works in two steps:
- Criterion-wise scoring: a VLM is prompted to rate the text on each criterion separately. The rating is then smoothed using the model's token probabilities.
- Aggregation: the per-criterion ratings are combined with weights derived from the variance of each rating distribution, so more confident judgments count more.
To test such metrics across tasks, the authors also release MMHE, a benchmark of expert human ratings covering several multi-modal tasks and criteria. HarmonicEval correlates better with human judgments on MMHE than conventional metrics. It is also state-of-the-art or competitive on standard captioning benchmarks, and its per-criterion scores show where a model's output is weak.
Key points
-
MMHE benchmark: 18,000 expert judgments spanning four tasks: referring expression generation (REG), VQA, image captioning (IC), and visual document understanding (VDU), the last of which involves reasoning over document images. Each candidate text was rated by three expert annotators.
-
Five criteria: Correctness, Completeness, Clarity, Fluency and Conciseness. Each is rated on a 1–5 scale using task-adapted prompts.
-
Harmonic weighting: a hyperparameter γ moves the aggregation between three modes:
- uniform averaging (γ = 1);
- inverse-variance weighting (γ = 0.5);
- choosing only the single most confident criterion (γ → 0).
The default is γ = 0.75.
-
Captioning benchmarks: the metric was also evaluated on Flickr8k-EX / CF, Composite, PASCAL-50S and FOIL.
-
Analysis of existing metrics: the paper examines which criteria overall-score metrics implicitly prioritise.
