ReFreeKV: Towards Threshold-Free KV Cache Compression

Paper · 2026 · Xuanfan Ni, Liyan Xu, Chenyang Lyu et al.

Summary

KV cache pruning methods such as H2O, SnapKV and CAKE can cut LLM inference memory with little loss, but only when the cache budget is tuned to each dataset or domain. In practice, inputs mix domains, lengths and difficulty levels, so a budget fixed in advance can sharply reduce quality. For example, a budget of about 20% is enough for D2O on LongBench, but GSM8K needs roughly 80%. The authors therefore propose a "threshold-free" objective: one input-insensitive setting should match full-cache quality on any input, and compression is pursued only after that requirement is met.

Their method, ReFreeKV, runs once after prefilling, using parallel operators:

  1. It ranks cache positions per layer and per head by position, drawing on the attention-sink effect.
  2. It evicts low-ranked entries until a universal norm-based stopping rule (Uni-Metric) fires.

Across 13 datasets covering math and commonsense reasoning, reading comprehension and coding, ReFreeKV matched or slightly beat full-cache scores while adapting the budget to each input. This matters for deploying compressed inference on unpredictable, open-domain traffic.

Key points

  • Mixed-domain tests with H2O, StreamingLLM and SnapKV showed that a budget giving full performance on one dataset can fail badly on another.
  • With Llama3-8B, ReFreeKV used about 63.7% of the KV cache on average and slightly exceeded full-cache scores across the 13 datasets.
  • The stopping rule uses a single 1% threshold on the change in the attention-matrix norm.
    • The matrix is reduced to its last row (k = 1), which keeps the cost independent of sequence length.
    • A 0.1% threshold barely helped, while 10% hurt quality.
  • Ablations showed that position-based ranking beats H2O-style ranking by attention scores.
  • The same configuration generalized to Llama3-70B, Qwen2.5-32B and Qwen2.5-72B.
  • Stated limitations:
    • Mistral-7B dropped about 1.5% versus full cache.
    • ReFreeKV sometimes keeps more cache than needed (84.3% on QMSum, where 50% would suffice).
    • There are no formal guarantees on performance loss.
