Improving Chain-of-Thought for Logical Reasoning via Attention-Aware Intervention

Paper · 2026 · Phuong Minh Nguyen, Dang Huu-Tien and Naoya Inoue

Summary

Many current LLM approaches to logical reasoning rely on multi-step interactive pipelines or on external symbolic solvers. Both add overhead and limit scalability. The authors instead propose a single-pass, non-interactive framework in which reasoning happens entirely inside the model. They build on Symbolic-Aided CoT, where rules are tagged as variables and symbolic operators (rule selection, inference, KB updating) are added to few-shot prompts. Attention analysis in Qwen3-8B shows that this structure makes certain heads display recognisable patterns tied to logical operations. They group these heads into three types: anchor, aggregation and copy heads. Their method, Attention-Aware Intervention (AAI), reweights attention scores in the selected heads at inference time. This helps the model focus on the rules relevant to the current step and suppress unrelated ones. Across several benchmarks and model families, AAI improves accuracy at almost no extra compute cost. With Qwen-3 32B, it reaches results competitive with systems that use GPT-4 together with solvers or interactive modules. The work connects attention-level interpretability with controllable symbolic reasoning.

Key points

  • Head taxonomy: The paper identifies three head types.
    • Anchor heads attend mostly to themselves and retain premise information.
    • Aggregation heads spread newly derived premises to later steps.
    • Copy heads show short diagonal patterns that copy premises into the KB.
  • Evaluation setup: AAI is tested on ProofWriter, PrOntoQA, Logical Deduction and FOLIO. The models are Qwen-3, Phi-4 and OLMo-2, ranging from 1.7B to 32B parameters.
  • Hyperparameters: The default settings are a binarization threshold of 0.04, a diagonal ratio of 0.3, a reweighting coefficient of 1.0 and a bias of 0. Sensitivity was examined on Logical Deduction and ProofWriter.
  • Hidden-state analysis: Visualizations of last-layer hidden states for Qwen3-8B show that AAI produces more compact and distinct clusters than standard CoT or Symbolic-Aided CoT.
  • Limitations and code: The authors note that evaluation is mainly on synthetic or mid-scale data and that the method depends on self-attention. Code is available at github.com/phuongnm94/aai_for_logical_reasoning.
