TalkLoRA: Communication-Aware Mixture of Low-Rank Adaptation for Large Language Models

Paper · 2026 · Lin Mu, Haiyang Wang, Li Ni et al.

Summary

Mixture-of-Experts variants of LoRA (MoELoRA) split adaptation across several low-rank experts, but each expert works in isolation. The authors argue this causes noisy, overconfident routing in which a few experts take most of the weight, especially in deeper layers, while the rest learn redundant features. TalkLoRA addresses this by letting experts exchange information before the router decides how to weight them. Each expert's low-rank projection of the input passes through a small learnable communication matrix, the Talking Module. The router then makes its decision from these mixed representations instead of from the raw input. To cut trainable parameters, part of each expert's up-projection is shared across all layers and part is kept layer-specific. A theoretical analysis argues that this design includes standard MoELoRA as a special case and dampens routing perturbations. In experiments, TalkLoRA beats LoRA, MoELoRA and recent LoRA variants on understanding and generation benchmarks under similar parameter budgets, and its expert load is more balanced. This makes it a cheap, practical improvement for MoE-style parameter-efficient fine-tuning.

Key points

  • Talking Module: an n×n matrix C (only O(n²) extra parameters) mixes the expert features A_j·x before dense softmax routing. Each expert's update is factorized as B_i·E_i·A_i, with B shared across layers and E unique to each layer.
  • Commonsense reasoning with LLaMA3-8B: TalkLoRA reaches up to 87.8% accuracy. With 4 experts and per-expert rank 8, it scores 87.6%, which is 0.9 points above HiRA and 6.8 points above standard LoRA.
  • More experts at the same total rank help:
    • At r = 32, 4 experts reach 87.6% versus 87.3% for 2 experts.
    • At r = 64, 4 experts reach 87.4% versus 86.9% for 2 experts.
  • Ablations:
    • Removing the Talking Module lowers accuracy from 87.6% to 86.5%.
    • Cross-layer sharing halves trainable parameters with comparable accuracy.
    • The learned C matrices are dense, neither diagonal nor sparse, and routing on OBQA becomes more balanced.
  • Limitations and code: inference latency is higher, and the method was not tested on very large models, code, math or multimodal tasks. Code is available at github.com/why0129/TalkLoRA.
