Adaptive Retrieval Without Self-Knowledge? Bringing Uncertainty Back Home
Paper · 2025 · Viktor Moskvoretskii, Maria Marina, Mikhail Salnikov et al.
Summary
Adaptive retrieval lets an LLM decide for each question whether it needs external documents. The goal is to keep the accuracy benefits of RAG without paying for retrieval that is unnecessary or even misleading. Recent pipelines for this task are usually judged on answer quality and retrieval counts. They rarely report how many LLM calls they make, rarely test whether the model can recognise its own knowledge gaps, and are seldom compared with classic uncertainty estimation.
The authors run a unified comparison of 35 approaches using LLaMA 3.1-8b-instruct, a BM25 retriever over Wikipedia, and six QA benchmarks:
- 8 published adaptive retrieval systems: IRCoT, AdaptiveRAG, FLARE, DRAGIN, Rowen variants and SeaKR.
- 27 uncertainty estimators computed with LM-Polygraph.
The benchmarks mix single-hop and multi-hop questions, and 10 metrics cover answer quality, self-knowledge and efficiency.
No method wins on every axis. Simple uncertainty scores generally match the elaborate pipelines in answer quality while being cheaper and better at detecting self-knowledge. In practice, lightweight confidence signals can often replace complex retrieval controllers.
Key points
- Datasets: SQuAD v1.1, Natural Questions and TriviaQA (single-hop), plus MuSiQue, HotpotQA and 2WikiMultiHopQA (multi-hop). Each uses a 500-question test subset taken from earlier work.
- Metrics and highlighted methods:
- QA quality: In-Accuracy, EM and F1.
- Self-knowledge: ROC-AUC and Spearman correlation.
- Efficiency: counts of LLM calls and retrieval calls.
- Ranks are averaged across datasets.
- The five strongest uncertainty methods are Lexical Similarity, Max Entropy, Mean Entropy, SAR and EigValLaplacian.
- Out-of-distribution transfer: QA scores barely change, but self-knowledge metrics drop clearly. The drop is similar for all methods.
- Complexity analysis: Rademacher complexity, loss-landscape sharpness and classifier sensitivity were measured. Internal-state and hybrid features are the most complex and generalise worst; logit-based features are the simplest.
- Real-world test and release:
- On a proprietary MTS AI set of 1,659 factual user queries with usefulness labels (0 / 0.5 / 1), uncertainty methods reduced retrieval calls with little loss in quality.
- Code and data are available at github.com/s-nlp/AdaRAGUE.
