MiniCPM4: Ultra-Efficient LLMs on End Devices
Paper · 2025 · MiniCPM Team, Chaojun Xiao, Yuxuan Li et al.
Summary
Running capable LLMs locally on phones, embedded boards and consumer GPUs is limited by compute, memory and the cost of attention over long contexts. The MiniCPM Team addresses this with MiniCPM4, released in 0.5B and 8B sizes, and with MiniCPM4.1, a hybrid model that can switch between deep reasoning and ordinary answering. Their approach changes the whole pipeline together:
- Architecture: a trainable sparse attention mechanism, InfLLM v2.
- Data: the UltraClean filtering pipeline, synthetic math and code data, and the UltraChat v2 SFT set.
- Training: a pre-training strategy search, load-balanced RL, and ternary quantization-aware training.
- Inference: a dedicated CUDA engine.
According to the authors, this lets an 8B model trained on only 8 trillion tokens match similar-sized open models such as Qwen3-8B. It also runs much faster on long inputs. The report claims roughly a 7× speedup at 128K context on end-side hardware, while its conclusion states a more general 5×. For practitioners with limited budgets, the takeaway is practical. Careful data selection and sparsity-aware design can stand in for sheer scale, and both the weights and the inference code are publicly available.
Key points
- InfLLM v2 is a trainable sparse attention design that speeds up both prefilling and decoding on long contexts. Speed was tested on Jetson AGX Orin and RTX 4090 up to 128K tokens.
- UltraClean judges data quality cheaply by adding candidate corpora to the last steps of an almost fully trained model. It then uses the selected seeds to train a quality classifier, which was applied to FineWeb and Chinese FineWeb to build UltraFineWeb.
- Training budget: pre-training used 8T tokens, about 22% of what Qwen3-8B used.
- Other components:
- ModelTunnel v2 for strategy search
- chunk-wise rollout RL
- BitCPM4 ternary models
- CPM.cu, which combines sparse attention, P-GPTQ quantization and speculative sampling
- ArkInfer for cross-platform deployment
- Applications: MiniCPM4-Survey and MiniCPM4-MCP. The latter is trained on Docker-hosted MCP servers and beats Qwen3-8B on human-annotated tool-calling tests.
