Unifying AI Tutor Evaluation: An Evaluation Taxonomy for Pedagogical Ability Assessment of LLM-Powered AI Tutors
Paper · 2025 · Kaushal Kumar Maurya, Kv Aditya Srivatsa, Kseniia Petukhova et al.
Summary
Evaluations of LLM-based tutors have so far used inconsistent, often subjective criteria. Definitions differ across studies, which makes systems hard to compare and progress hard to track. Standard NLG metrics are also a poor fit: they ignore pedagogy and usually need reference answers. The authors address this for one setting, remediating student mistakes or confusion in math dialogues. They propose a taxonomy of eight dimensions grounded in learning-sciences principles, such as promoting active learning and managing cognitive load, and it reconciles the schemes used in earlier work. Alongside the taxonomy they release MRBench, built from partial dialogues in MathDial and Bridge that stop at a student error. Each dialogue is paired with responses from seven LLM tutors plus a human tutor, and all responses carry human gold labels on every dimension. Their human evaluation finds that strong models such as GPT-4 answer questions well but often tutor poorly. When Prometheus2 and Llama-3.1-8B are tested as automatic judges, their scores correlate poorly with human ratings. The resources are meant to standardize tutor evaluation and could support fine-tuning or RLHF datasets.
Key points
-
The eight dimensions assess whether the tutor recognizes the student's error, pinpoints where it occurs, and gives away the answer, along with providing guidance, actionability, coherence, tutor tone and human-likeness.
-
MRBench contains 192 conversations and 1,596 annotated tutor responses, derived from MathDial and Bridge.
-
With Prometheus2 and Llama-3.1-8B as judges, correlations with human labels were mostly negative. Only human-likeness showed a weak positive correlation.
-
The paper motivates the work with earlier findings by Macina et al. (2023): ChatGPT as a tutor gave away the solution 66% of the time and gave incorrect feedback 59% of the time.
-
The authors list several limitations:
- Dimensions are scored independently, at the level of single turns.
- The taxonomy covers only mathematics.
- Effects on student learning are not measured.
- Only two judge LLMs and one prompt were tested.
