SSSD: Simply-Scalable Speculative Decoding

Paper · 2026 · Michele Marzollo, Jiawei Zhuang, Niklas Roemer et al.

Summary

Speculative decoding speeds up LLM inference by drafting several future tokens and having the target model check them all at once in one forward pass. The strongest variants, such as EAGLE-3, depend on trained draft models or extra heads. These are costly to build, awkward to deploy, and lose accuracy when the workload moves to new languages, domains or long inputs. SSSD avoids all training. It drafts on the CPU by combining two n-gram sources. The first is a trie built over the prompt and the tokens generated so far. The second is a large suffix-array datastore, built REST-style, that can start empty and fill itself with the model's own past outputs. Candidates from both sources are merged into a weighted tree for verification. Speculation length is adjusted to the hardware's characteristics. Evaluated end to end in SGLang, SSSD cuts latency by up to 2.9× versus autoregressive decoding and roughly matches training-based methods. It is more robust under language and domain shift, in long-context settings and for reasoning models. This makes it a practical, low-maintenance option for production serving, including for lower-resource languages.

Key points

  • Training-free drafting: no data preparation, training or tuning is needed, and drafting runs on the host CPU.

    • The datastore keeps size in check by dropping its oldest entries rather than pruning, since every pruning strategy tested lowered acceptance rates.
    • Lookups use a draft prefix of P = 4 tokens.
  • Long-context summarization on PG-19 (up to 40k tokens), speedups over autoregressive decoding:

    ModelSSSDLookaheadEAGLE-3
    Llama-3.1-8B1.23×1.08×0.80×
    Llama-3.3-70B1.26×1.15×1.09×
  • Agentic workloads: SSSD reaches up to 1.9× better throughput and latency than autoregressive decoding, and 1.66× over EAGLE-3.

  • Reasoning: tested with a distilled DeepSeek-R1 model on harder MATH-500 questions, using sampling (temperature 0.6) and an 18 GB datastore of reasoning traces.

    • SSSD gives a 2.29× speedup at batch size 1 and 1.32× over the best competing method.
    • It is the only method that still speeds up decoding at large batch sizes.
  • Limitations: gains are smaller for MoE models and MLA-attention models. The drafting step also relies on CPU performance and needs host memory. Code is available at github.com/huawei-csl/sssd_speculator.
