Fine-Mem: Fine-Grained Feedback Alignment for Long-Horizon Memory Management

Paper · 2026 · Weitao Ma, Xiaocheng Feng, Lei Huang et al.

Summary

LLM agents working on long-horizon tasks need a memory system that turns a stream of incoming text chunks into a compact, usable store. Recent RL-trained memory managers learn only from final downstream QA accuracy. That signal is sparse and does not show which individual memory operations helped. Fine-Mem addresses this with two denser reward signals:

  • Chunk-level Step Reward (CSR): scores each step using automatically built factoid questions about the current chunk.
  • Evidence-Anchored Reward Attribution (EARA): traces the memory items the reasoning agent actually retrieved back to the steps that wrote them, then shifts part of the global reward onto those steps.

The manager is trained with GRPO and edits a flat memory using INSERT, UPDATE, DELETE and SKIP. A fixed reasoning agent then answers queries over this memory using BM25 retrieval. On Memalpha and MemoryAgentBench, Fine-Mem beats seven baselines across every sub-task, and the gains carry over to other reasoning models and manager backbones. The work shows that fine-grained credit assignment makes small, cheap memory managers practical.

Key points

  • Fine-Mem improves over seven baselines by 4.4% on average on Memalpha and 7.2% on MemoryAgentBench. Its top results cover Long-Range Understanding, Accurate Retrieval and Test-Time Learning, and its memory stays relatively compact.
  • CSR questions are generated with GPT-4o-mini and checked by a verifier that must answer them from the chunk alone. Five QA pairs are kept per chunk.
  • EARA mixes the uniform global reward with evidence-based credit through a factor β, with a default of 0.5.
  • Across backbones, the average score improves from:
    • 0.601 to 0.663 for Qwen3-4B
    • 0.491 to 0.625 for Qwen3-1.7B
    • 0.637 to 0.653 for Llama3.2-3B
  • Stated limitations:
    • Retrieval is BM25 only.
    • Memory is text-only.
    • The reasoning agent is not co-trained with the manager.
  • Code is available at github.com/LVYUERLVR/Fine-Mem.
