Mock Worlds, Real Skills: Building Small Agentic Language Models with Synthetic Tasks, Simulated Environments, and Rubric-Based Rewards

Paper · 2026 · Yuanjie Lyu, Chengyu Wang, Lei Shen et al.

Summary

Small language models usually lag well behind large, expensive LLMs on agentic tool-use tasks. Reinforcement learning could help, but two obstacles hold it back. Public agentic datasets are narrow and often too easy, so RL rollouts give little learning signal. Real APIs are also costly, unstable and limited in scope. SYNTHAGENT tackles both problems. A strong teacher LLM starts from Persona Hub backgrounds and generates new tasks, each paired with its own virtual tool set and high-level workflow. The tasks are then rewritten as deliberately vague instructions, while the missing details are kept in a private context held by a simulated user. During rollouts, an LLM plays both the user and the tools, and a per-task memory of earlier calls keeps tool replies consistent. Rewards come from rubrics built from subgoals, required user interactions and forbidden actions, all checked against teacher executions. Across 14 math, search and tool-use benchmarks, 8B–14B Qwen3-based models improve substantially and sometimes match larger open models. This points to cheap, scalable synthetic environments as a practical way to build capable small agents.

Key points

  • Rewards are set to zero whenever a forbidden behavior occurs. Otherwise they count completed subgoals and add credit for required user interactions. Tasks are discarded if the teacher's trajectories leave too much of the workflow unexecuted.
  • In the ablation, SYNTHAGENT-8B reaches 38.2 on BFCL-V4 Multi-turn, compared with 15.0 for base Qwen3-8B. Training without the information gap brings almost no benefit from the tool-use data.
  • The training mix includes only 4,000 ToolStar math/search instances. Even so, SYNTHAGENT-8B beats Qwen3-14B in the non-thinking setting and also outperforms another 8B model whose training used 30,000 instances drawn from ToolStar.
  • Swapping the tool simulator from Qwen3-30B-A3B-Instruct to Qwen3-235B brings no improvement. Raising the number of teacher demonstrations per rubric from 2 to 4 gives no significant gain either.
  • Evaluation covers TAU-2 Bench (Airline, Telecom, Retail), BFCL-V4 and reasoning tasks. Code and prompts are released at github.com/haruhi-sudo/SYNTHAGENT.
