KV-Latent: Dimensional-level KV Cache Reduction with Frequency-aware Rotary Positional Embedding

Paper · 2025 · Shi Luohe, Zuchao Li, Lefei Zhang et al.

Summary

Decoder-only LLMs store keys and values for every generated token. This KV Cache grows with sequence length and becomes a major limit on memory and bandwidth during inference. KV-Latent tackles this at the level of individual head dimensions, a direction earlier head-, layer- and token-level methods have left largely unexplored. The authors shrink the per-head Key/Value size of pretrained models, projecting them into a smaller latent space. They then recover quality through brief two-stage additional training, costing under 1% of the original pre-training budget. Query/Key and Value/Output dimensions (d qk, d vo) are allowed to differ.

Low-dimensional heads make Rotary Positional Embedding unstable, because high-frequency components inject noise. To fix this, the authors redesign RoPE's frequency sampling: they drop high frequencies and amplify low ones, which keeps the decay of attention with distance.

On LLaMA-3-8B (GQA) and LLaMA-2-7B (MHA), halving head size cuts the KV Cache by 50% with only modest benchmark losses. This makes the method a practical, orthogonal addition to existing cache-saving techniques.

Key points

  • LLaMA-3-8B with (d qk, d vo) = (64, 64):
    • KV Cache shrank from 491 to 245 MB and time-to-first-token dropped by about 8%.
    • The average over 0-shot MMLU, OBQA and AI2ARC went from 42.1 to 41.3.
    • Needle-in-a-haystack retrieval stayed at 92%.
  • Lower bound at (16, 16): compression reached 87%, but performance was not recovered (NIH fell to 6%).
  • LLaMA-2-7B (MHA) with (64, 64): cache went from 1966 to 983 MB, latency improved by about 17%, and the benchmark average moved from 29.7 to 28.3.
  • Values matter more than keys: giving more dimensions to d vo than to d qk consistently produced better quality and efficiency.
  • Compatibility: KV-Latent combines with token-level PyramidInfer for a total 75% cache reduction. Raising the LoRA rank lengthened training while barely changing log PPL. Training ran on 8× A100 80G, and code is at github.com/ShiLuohe/KV-Latent.
