Sparse-RL: Breaking the Memory Wall in LLM Reinforcement Learning via Stable Sparse Rollouts
Paper · 2026 · Sijia Luo, Xiaokang Zhang, Yuxuan Hu et al.
Summary
Long reasoning rollouts in LLM reinforcement learning store large KV caches. This memory cost limits batch sizes and GPU utilization, especially since rollout generation takes most of the training time. The authors ask whether training-free KV compression, built for inference, can be used during rollouts. They find that doing so naively breaks training: the compressed (sparse) sampler drifts from the dense old policy and the learner, and compression produces degenerate outputs such as endless repetition. Rewards collapse and gradients explode.
Sparse-RL addresses this with two fixes based on the probability ratio between the sparse and dense policies:
- Sparsity-Aware Rejection Sampling removes anomalous trajectories.
- Importance-based Reweighting corrects the off-policy bias in the remaining samples.
The method does not depend on any particular compression operator. It was tested with GRPO on Qwen2.5 models and math reasoning benchmarks. Under a fixed token budget, it roughly matches dense rollouts, and models trained this way handle sparse inference better at deployment.
Key points
- The evaluation spans 7 benchmarks (e.g., GSM8K, MATH500, Gaokao, Minerva, OlympiadBench), covering 4 models and two KV compression techniques, one of which is R-KV.
- Naive GRPO with R-KV on Qwen2.5-7B collapses after about 200 steps. Sparse-RL keeps rewards rising and gradient norms low.
- Sparse-RL beats dense rollouts on Qwen2.5-1.5B and keeps over 96% of dense performance up to 7B. A 512-token KV budget was enough to approach FullKV quality.
- On Qwen2.5-3B, the average rejection rate was 0.07 and the clip ratio 0.0005. Under R-KV sparse inference, the Sparse-RL model gained 7.6 points on MATH500 over GRPO-Dense.
- Code and data are released at github.com/RUCKBReasoning/Sparse-RL. Open-ended tasks and the extra cost of rejected samples are left for future work.
