Mending the Holes: Mitigating Reward Hacking in Reinforcement Learning for Multilingual Translation
Paper · 2026 · Yifeng Liu, Siqi Ouyang, Yatish H R et al.
Summary
LLM translation quality drops sharply for low-resource languages, and the usual post-training fixes require parallel or preference data that these languages often lack. The authors ask whether reinforcement learning on monolingual text alone can close this gap. Without references, the reward must come from source-based quality estimation (QE). The paper shows that strong QE metrics such as xCOMET and MetricX have blind spots ("holes"). They fail to penalize outputs in the wrong language, untranslated copies of the source, over- or under-translation, and self-generated references. RL training exploits and amplifies these holes, which is a form of reward hacking.
The proposed method, WALAR, keeps MetricX as the base reward and adds two corrections. A word alignment score checks that the source is fully covered without invented content. A language alignment check based on GlotLID confirms the output is in the target language. Training uses GRPO on Qwen3-8B, LLaMAX3-8B-Alpaca and Translategemma-4B-it. The resulting models beat the strong open baseline LLaMAX across 1,414 FLORES-101 directions, and the gains extend to target languages not seen in training. This offers a parallel-data-free route to better low-resource MT.
Key points
- Reward design:
- The QE component is MetricX-24-Hybrid-XXL, which scores in the range [−25, 0] and is built on mT5, covering 101 languages.
- GlotLID, which identifies over 1,600 languages, handles language identification.
- The word alignment term is weighted by α.
- Choosing α: Sweeping α over 0, 5, 10, 15, 20 and 25 on the FLORES-101 validation set with LLaMAX3-8B-Alpaca raised average spBLEU from 12.88 to 19.71 at α = 20. α = 25 was the worst setting on all three metrics. The authors favored spBLEU for model selection because neural metrics may be inflated when they are also the training target.
- Human evaluation against LLaMAX3-8B-Alpaca:
- On Azerbaijani–Portuguese, WALAR won 42% of comparisons and tied 34%.
- On English–Kannada, it won 51% and tied 39%.
- Generalization: On 303 directions ({En, Ar, Zh}→x), WALAR improved translation into target languages both seen and unseen during training.
- Limitations:
- The method requires languages supported by QE and embedding models.
- QE models are weaker on low-resource languages.
- Word alignment depends on tokenizers for unsegmented scripts such as Chinese and Japanese, and these are often unavailable for low-resource languages.
