MemCoRL: Alternating Co-Optimization of Memory Retrieval and Utilization via Collaborative Reinforcement Learning
Paper · 2026 · Yuewen Liu, Peng Xu, Muxi Diao et al.
Summary
LLMs with fixed context windows have trouble carrying information across long interactions. External memory systems such as A-Mem, Mem0, MemGPT and RMM mostly improve how memory is stored or retrieved. They pay little attention to how the model actually uses the retrieved evidence. MemCoRL addresses this gap by treating retrieval and utilization as two linked policies and training them in alternation with GRPO.
- Retrieval policy: it gathers and condenses evidence from the dialogue history. Its reward depends on whether a frozen utilization policy cites that evidence. Once the citation reward converges, an LLM-as-judge reward for answer correctness is added to stop reward hacking.
- Utilization policy: its reward is a linear mix of semantic similarity and lexical overlap with the gold answer.
Repeating these rounds creates a feedback loop in which each policy's improvement strengthens the other. On LoCoMo (long-term conversational memory) and LongBench (contextual memory), the method beats leading baselines on F1, BLEU and LLM-as-judge. This suggests that optimizing memory use matters as much as memory architecture.
Key points
- Both policies are trained with GRPO and run on Qwen2.5 base models (7B and 14B variants appear in experiments).
- Using only the citation reward led the retriever to produce hallucinated evidence. Adding the semantic LLM-as-judge reward after convergence mitigated this, as the ablations confirm.
- Single-policy RL already helps:
- LoCoMo (LLM-as-judge): retrieval-only training gave about +47% over the base model, and utilization-only about +41%.
- LongBench (F1): retrieval-only gave about +110%, and utilization-only about +108%.
- One round of joint co-optimization gave about +80% over the base model and about +20% over single-policy RL on LLM-as-judge. Further rounds kept improving results until convergence, with the largest gains on harder tasks and larger models.
- Limitation: memory storage and management are outside the training loop, so the pipeline is not end-to-end.
