Enrich-on-Graph: Query-Graph Alignment for Complex Reasoning with LLM Enriching
Paper · 2025 · Songze Li, Zhiqiang Liu, Zhengke Gui et al.
Summary
LLMs that answer questions over knowledge graphs (KGQA) still hallucinate or make factual mistakes. The authors trace this to a semantic gap between query and graph. A question has a narrow goal and a short logical path, while the KG holds many unrelated facts about the topic entity (focus mismatch). The KG also encodes the needed link through longer chains with opaque intermediate nodes and untyped entities (structure mismatch). Existing systems such as ToG, DoG and RoG reason over the raw graph with iterative pipelines or fine-tuning, which is costly. Enrich-on-Graph (EoG) instead reshapes the graph to fit the query, in three stages:
- parsing the query and recasting graph content as query-like quadruples;
- focus-aware multi-channel pruning;
- LLM-based enrichment that adds structural shortcuts and type hierarchy from the model's prior knowledge.
The authors show that their objective is equivalent to maximizing mutual information between query and graph. On CWQ and WebQSP, EoG reaches state-of-the-art results at low cost. Its enrichment module also works as an add-on for other KGQA methods.
Key points
- Evaluation uses two KGQA benchmarks, CWQ and WebQSP, reporting Hit@1 and F1. The approach relies on ChatGPT-series LLMs, and scaling to other model sizes is left for future work.
- Three new graph quality metrics are proposed: Relevance, Semantic Richness and Redundancy.
- EoG makes 4 LLM calls per query. It uses 45.8% fewer tokens than ToG and 83.6% fewer than DoG. The pruning stage alone reduces token usage by 92.8%.
- Adding the Enrich module to other methods improves them:
- RoG on CWQ: Hit@1 from 62.2 to 75.4 and F1 from 55.4 to 68.7.
- ToG on WebQSP: Hit@1 from 82.6 to 89.4.
- KG-CoT and DoG also improve.
- The enrichment builds a general-domain ontology hierarchy. Domain-specific hierarchies may be needed for specialized tasks. Code and data are available at github.com/zjukg/Enrich-on-Graph.
