ARGS: Alignment as Reward-Guided Search
Paper · 2024 · Maxim Khanov, Jirayu Burapacheep and Yixuan Li
Summary
Most alignment pipelines for large language models rely on RLHF with PPO. This kind of training is costly and often unstable, and it must be rerun whenever the reward model changes. ARGS moves alignment out of training and into inference. At every generation step, the base model proposes its top-k candidate tokens. A separately trained reward model scores each candidate continuation, and that reward, scaled by a weight w, is added to the model's own score. The next token is then picked greedily (ARGS-greedy) or sampled with a temperature (ARGS-stochastic). When w is zero, the procedure reduces to ordinary decoding. The authors test it on HH-RLHF and Stanford Human Preferences (SHP) with LLaMA and OPT models of several sizes. ARGS consistently raises average reward over standard decoding methods while keeping outputs diverse and coherent. GPT-4 judges also tend to favor its answers. This matters because a model can be re-aligned to a new reward signal without any retraining.
Key points
- With greedy-style selection, ARGS increases average reward by 19.56% over the baseline. It wins or ties in 64.33% of GPT-4 pairwise comparisons.
- The cost per decoding step grows only by a constant factor k (the number of candidates). Total complexity is O(k·m²), versus O(m²) for classical decoding.
- On LLaMA-7B, average reward rises from 3.981 with greedy decoding to 5.026 with ARGS-greedy. On LLaMA-7B-SFT, it rises from 5.732 to 6.872.
- The qualitative examples use w = 1.5 and k = 10. The authors note that a stronger reward model yields better generations. Code is available at github.com/deeplearning-wisc/args.
- Stated limitations: evaluation covers only standard preference benchmarks. Multi-step reasoning tasks are left for future work.
