PAG: Multi-Turn Reinforced LLM Self-Correction with Policy as Generative Verifier
Paper · 2025 · Yuhua Jiang, Yuwen Xiong, Yufeng Yuan et al.
Summary
LLMs can write elaborate reasoning but are poor at judging whether their own answers are right. Existing fixes have drawbacks. A separate verifier model adds cost. Multi-stage RL pipelines such as SCoRe need a warm-up phase to avoid model collapse, where the second attempt barely differs from the first. PAG instead trains a single model to switch between two roles within multi-turn reinforcement learning. As a policy, it writes a solution. As a generative verifier, it checks that solution step by step and declares it right or wrong. The model writes a new attempt only when its self-check flags an error. The loop ends once an answer is judged correct or a turn limit is reached. Training starts directly from instruction-tuned Qwen and Llama models, with no warm-up stage. On math reasoning benchmarks, PAG improves both first-attempt and post-correction accuracy. Its self-verification also selects best-of-N candidates better than majority voting. This suggests robust self-correction is possible without extra models or complex curricula.
Key points
- Selective revision: a revision is triggered only when the model's own verifier verdict says "wrong". SCoRe, by contrast, always produces a second attempt. The verification step counters model collapse.
- Turn-independent optimization is essential: without it, advantages leak from later policy turns into the verifier. The verifier then always answers "wrong", with correct recall falling to zero.
- Ablation (Qwen2.5-1.5B-Instruct, MATH500): RoleAdvNorm combined with reward shaping reaches 62.2% Acc.@t1 and 65.2% Acc.@final. Either technique alone gives no gain.
- Inference scaling: sequential self-correction with K = 8 beats parallel sampling with K = 32 under majority voting, about 4× more compute-efficient. Raising training turns from 2 to 4 adds 1.0% Acc.@final at 8 policy attempts.
- Limitation: training still relies on external ground-truth checkers for rewards, which limits use to tasks where answers can be verified.
