TIFA: Accurate and Interpretable Text-to-Image Faithfulness Evaluation with Question Answering

Paper · 2023 · Yushi Hu, Benlin Liu, Jungo Kasai et al.

Summary

Automatic metrics for checking whether a generated image matches its prompt are weak. CLIPScore compresses image and text into single embeddings and handles counting or composition poorly. Caption-based scores depend on what a captioner happens to mention. The authors propose TIFA, a reference-free metric that turns the prompt into multiple-choice questions with expected answers. GPT-3 writes the question–answer pairs, and UnifiedQA discards pairs whose answer cannot be recovered from the text. A VQA model then answers the same questions by looking at the generated image, and the score is the share of correct answers. Because each question targets one element, failures can be traced to concrete categories such as objects, counts or spatial relations. TIFA agrees with human ratings considerably better than earlier metrics. The released TIFA v1.0 benchmark gives different studies a common basis for comparing text-to-image models. Its analysis shows that current systems render color and material well but have trouble with counting, spatial layout and scenes with several objects.

Key points

  • Correlation with humans: TIFA reaches Spearman's ρ = 0.60, compared with 0.33 for CLIPScore and 0.34 for caption-based scoring.
  • TIFA v1.0 benchmark:
    • Contains about 4K prompts drawn from MSCOCO captions, DrawBench, PartiPrompts and PaintSkill.
    • Includes roughly 25K questions in 12 categories, covering about 4.5K distinct elements.
  • Choice of VQA model:
    • mPLUG is the default. It was the most accurate against human answers (84.5% accuracy, 0.768 correlation) and took about 0.25 s per question.
    • BLIP-2 scored 81.0% accuracy and 0.756 correlation but was about three times slower.
  • Human check of errors:
    • Annotators answered 1029 questions on 126 images, with Krippendorff's α = 0.88.
    • With mPLUG, fewer than 25% of wrong answers were caused by the VQA model; the rest came from the generated images themselves.
  • Limitations:
    • TIFA is slower than CLIP, at about 1.6 s per image with mPLUG.
    • It relies on VQA quality, which may break down in domains such as anime or abstract art.
    • Its modular design lets the LM, QA and VQA components be swapped for stronger ones later.
