TeleChat Technical Report
Paper · 2024 · Zhongjiang He, Zihan Wang, Xinzhang Liu et al.
Summary
TeleChat is a family of open bilingual (Chinese–English) large language models from China Telecom, with 3B, 7B and 12B parameters, released as base and chat versions. The authors address a gap in openness. Many Chinese-oriented LLMs document their pretraining but reveal little about how the chat variants are instruction-tuned, including data mixing, multi-turn formatting and other tricks.
The team trained decoder-only transformers from scratch on trillions of tokens. The sources include web pages, books, papers, code and industry documents, all processed through a multi-step cleaning pipeline. The architecture is based on GPT-3 with modifications borrowed from LLaMA and BLOOM, and the context window was extended past 96k tokens. Alignment combines supervised fine-tuning, whose recipe is described in detail, with reinforcement learning. The report also covers parallel training and a knowledge-graph approach to reducing hallucinations.
Across public benchmarks for understanding, math, reasoning, code and knowledge QA, TeleChat performs comparably to open models of similar size. Its main contribution is transparency: the release includes chat checkpoints, code and part of the cleaned pretraining corpus.
Key points
- Three sizes: TeleChat-3B (14 layers, hidden size 4096, vocab 82,944), TeleChat-7B (30 layers, hidden 4096) and TeleChat-12B (38 layers, hidden 5120). The 7B and 12B models share a 160256-token vocabulary. Fine-tuned 7B and 12B checkpoints are public, along with about 1TB of pretraining text.
- Architecture choices:
- RoPE was chosen over ALiBi because ALiBi does not work with Flash Attention v2.
- Normalization uses RMSNorm in a pre-norm setup; the 3B model adds an extra norm after the embedding layer.
- Activations use SwiGLU, with the FFN size set manually rather than at the usual 8/3 ratio.
- Long-context support beyond 96k tokens relies on three techniques: Dynamic NTK-aware interpolation, multi-stage long-context training during SFT, and LogN-Scaling at inference.
- Data cleaning involves four steps: rule-based filtering, deduplication (corpus, document and paragraph levels), high-quality selection and security processing. Domain-specific data was collected from twenty industry sectors aligned with national classifications, such as finance, construction and health.
- The SFT recipe includes dataset blending and noisy-embedding fine-tuning (NEFTune). The appendix shows qualitative examples where NEFTune yields richer answers.
